VRAG-RL: Empower Vision-Perception-Based RAG for Visually Rich Information Understanding via Iterative Reasoning with Reinforcement Learning
Paper · 2025 · Qiuchen Wang, Ruixue Ding, Yu Zeng et al.
Summary
Answering questions over visually rich documents such as slides, reports, charts and tables is difficult for standard RAG. Text-only pipelines miss visual content. Existing vision-based RAG systems follow rigid pipelines, and they tend to simply place retrieved images into the context without reasoning over them. VRAG-RL, from Tongyi Lab (Alibaba), uses reinforcement learning (GRPO) to teach VLMs to alternate between thinking, issuing search queries, and inspecting retrieved pages. A key addition is a set of visual perception actions that let the model select, crop and zoom into dense regions, moving from a coarse view to a fine one. The reward also goes beyond final-answer correctness. It credits how well the model's rewritten queries retrieve the relevant pages, and it uses an evaluator model to judge answers. The authors re-annotated existing document datasets and built a pipeline that generates RL and SFT data at scale. Across several demanding benchmarks, VRAG-RL improves on prior methods by roughly 20–30%. This suggests that perception-aware, retrieval-aware RL is a practical route to stronger multimodal document QA.
Key points
- Base models and gains: Qwen2.5-VL-7B improves about 20% over existing methods, and Qwen2.5-VL-3B improves about 30%. Code is published at github.com/Alibaba-NLP/VRAG.
- Action space: the model can search, answer, or emit
<region>…</region>tokens containing a bounding box. The selected area is cropped from the raw high-resolution image and fed back to the model. The interaction follows a ReAct-style Thought–Action–Observation loop. - Reward design: the reward combines three parts:
- a pattern/format reward;
- a retrieval reward computed with NDCG against the golden images across all search rounds;
- a model-based outcome reward.
- Why a model-based reward: the authors found exact match too strict as a training signal. Recall-based rewards invited reward hacking through repetitive answers. The model-based reward trained more stably.
- Trade-off: multi-turn interaction adds latency compared with vanilla RAG. However, the model avoids the repeated search loops seen in prompt-based ReAct RAG, and answer quality improves.
