WebWalker: Benchmarking LLMs in Web Traversal

Paper · 2025 · Jialong Wu, Wenbiao Yin, Yong Jiang et al.

Summary

Search-engine retrieval in standard RAG pipelines tends to return surface-level pages. Answers buried several clicks deep inside a website are often missed. The authors call this problem Web Traversal: starting from a site's root URL, an agent must click through subpages to find the information a query needs. To measure it, they built WebWalkerQA, a bilingual (English/Chinese) question-answering benchmark drawn from official websites in four domains. GPT-4o generated candidate QA pairs from recursively crawled subpages, and crowd workers then verified them. Questions need either one deeply nested page (single-source) or evidence combined from two pages (multi-source), and they are graded by depth into easy, medium and hard. As a baseline, they propose WebWalker, a click-only multi-agent system. An explorer agent navigates, and a critic agent keeps memory and decides when to answer. Both closed and open LLMs, as well as commercial RAG products, score poorly. Feeding WebWalker's gathered memory into a RAG pipeline improves accuracy, which suggests that deep in-site exploration complements broad search.

Key points

  • WebWalkerQA has 680 verified QA pairs covering more than 1,373 webpages in the conference, education, organization and game domains. About 14k unverified "silver" pairs are also available. Code and data are at github.com/Alibaba-NLP/WebAgent.
  • Single-source questions span subpage depths 2–4. For multi-source questions, the combined depth of the two pages ranges from 2 to 8. Multi-source questions are harder for RAG systems.
  • WebWalker uses a ReAct-style explorer agent (thought, action, observation) together with a critic agent that manages memory and produces the answer.
  • Among commercial and open RAG systems, Tongyi scored best at only about 40%. Adding WebWalker (Qwen-2.5-Plus backbone) to a naive RAG pipeline raised accuracy at every difficulty level, with the largest gains on multi-source questions.
  • Allowing more actions (K from 5 to 25) improved performance, pointing to vertical exploration as a way to scale inference-time compute in RAG.
