Generalizable LLM Learning of Graph Synthetic Data with Post-training Alignment
Paper · 2026 · Yizhuo Zhang, Heng Wang, Shangbin Feng et al.
Summary
Earlier work improved LLM graph reasoning by supervised fine-tuning (SFT) on synthetic graph puzzles. That helps with algorithmic problems, which classical algorithms already solve exactly, but it does not reliably carry over to real tasks with hidden graph structure. The authors test whether post-training alignment can make learning from synthetic graphs transfer better. They build training data from connectivity and shortest-path problems taken from NLGift. They then design two rule-based rewards: one checks only the final answer, and the other also verifies each intermediate step by rebuilding the graph with NetworkX. Using GRPO and DPO, they align Qwen2.5 (7B) and Llama3.1 (8B), starting either from the base model or from an SFT checkpoint. Evaluation covers held-out synthetic problems and eight real-world settings in multi-hop QA, structured commonsense reasoning and action planning. Alignment brings statistically significant gains on five datasets, averaging about 13% over baselines. However, it does not fix every task. Models still struggle to compose correct single steps into a correct multi-step solution, and they hallucinate in intermediate steps.
Key points
- Training data: 500 questions per task per split for connectivity and shortest path, with graphs described in natural language. Responses must follow a think/response/answer tag format.
- Reward scheme:
- +0.2 for overall format
- +0.1 for process format
- +1 for a correct solution
- −2 for hallucinated edges or weights
- Real-world benchmarks: StrategyQA, Knowledge Crosswords, WikiDYK, ExplaGraphs, Proscript and two Blocksworld versions. Prior SFT alone had cut Proscript performance by 12.5%.
- Main results:
- Connectivity accuracy rises about 25% on average after alignment.
- GRPO beats DPO by roughly 5% on average.
- With GRPO, process-based rewards beat solution-based ones by about 24% on synthetic tasks, but show no clear advantage on real-world tasks.
