Advancing LLM Reasoning Generalists with Preference Trees
Paper · 2024 · Lifan Yuan, Ganqu Cui, Hanbin Wang et al.
Summary
Open-source LLMs still lag far behind proprietary systems on hard, varied reasoning problems. The authors attribute this to scarce high-quality alignment data and to little study of preference learning for reasoning. They build ULTRAINTERACT, a dataset of difficult math, coding and logic problems drawn from 12 existing datasets with ground-truth answers. Each problem is stored as a preference tree. GPT-3.5 Turbo acts as the solver, splitting tasks into sub-steps and running code in a Python interpreter. GPT-4, given the reference answers, provides critiques. Correct and incorrect actions are then paired. Using this data with SFT and preference learning, they train the EURUS models on Mistral-7B and CodeLlama-70B. These set a new open-source state of the art, and EURUS-70B matches GPT-3.5 Turbo. Their analysis suggests DPO suits reasoning poorly because it lowers the rewards of correct answers. This motivates a new reward-modeling objective. The work matters because it releases open data, models and insights for building reasoning generalists.
Key points
- ULTRAINTERACT has 86K instructions and 220K correct/incorrect action pairs. Each instruction forms a tree that combines multi-turn interaction with environment feedback and critique.
- EURUS-70B scores 33.3% pass@1 on LeetCode and 32.6% on TheoremQA, beating other open models by more than 13.3%. It also outperforms GPT-3.5 Turbo across 12 benchmarks covering five tasks.
- Preference learning on top of SFT helps with KTO and NCA but reduces accuracy with DPO. Higher final rewards for chosen responses track better reasoning performance.
- The authors extend the Bradley-Terry objective to explicitly push chosen rewards up and rejected rewards down. The resulting EURUS-RM-7B agrees with human judgments better than all existing models, including GPT-4, on AutoJ and MT-Bench.
- In ablations, training on ULTRAINTERACT alone weakens instruction following, so it works best mixed with other alignment data. Models and data are released at github.com/OpenBMB/Eurus.
