Towards the Law of Capacity Gap in Distilling Language Models

Paper · 2025 · Chen Zhang, Qiuchi Li, Dawei Song et al.

Summary

Knowledge distillation compresses a large teacher language model into a smaller student. However, a bigger teacher does not always produce a better student. This "curse of capacity gap" means the best teacher size for a given student is usually found by distilling from many teachers, which is too costly for LLMs. The authors run a pilot study on models below 3B parameters, using the GPT2 and Pythia families. Each student is created by structurally pruning a teacher and is then distilled on OpenWebText. Students are evaluated by perplexity on WikiText2. Across model families and data scales, the optimal teacher size grows linearly with the student size. They call this regularity the law of capacity gap. They then extrapolate the law to 7B-scale LLMs and distill the MiniMA family. MiniMA sets a new compute–performance Pareto frontier. Its instruction-tuned variant, MiniChat, competes with considerably larger chat models. The law matters because it removes the costly search for the optimal teacher in LLM distillation.

Key points

  • Pruning method:
    • Attention heads, FFN intermediate neurons and hidden states are ranked by expressive scores, computed from accumulated absolute gradients and ℓ2-normalized.
    • To reach a target overall sparsity p, each component is pruned to a ratio of 1 − √(1 − p).
  • GPT4-judged benchmarks: On Vicuna-Bench and BELLE-bench, MiniChat clearly beats the scale-matched OpenBuddy-3B. It trails only BiLLa-7B on Vicuna-Bench and ChatGLM2-6B on BELLE-bench.
  • Ablation scores for MiniMA:
    • MMLU 28.51
    • CEval 28.23
    • DROP 22.50
    • BBH 31.61
    • GSM8K 8.11
    • HumanEval 10.98
  • Ablation findings:
    • Global pruning, layer dropping, patient knowledge distillation and a 5B teacher assistant bring no consistent improvement over MiniMA.
    • Plain KD is roughly on par with these more elaborate techniques.
  • Release and limitations:
    • Code is available at github.com/GeneZC/MiniMA, and the models are on Hugging Face.
    • Data scale, data mixture and distillation technique are not treated as scaling factors.
    • MiniChat has no preference-optimization stage.
