ALDEN: Reinforcement Learning for Active Navigation and Evidence Gathering in Long Documents
Paper · 2026 · Tianyu Yang, Terry Ruas, Yijun Tian et al.
Summary
Vision-language models (VLMs) read single text-rich pages well but struggle when an answer requires reasoning across long, multi-page documents. Processing the full file is costly and noisy, and typical RAG pipelines follow fixed, prompt-driven workflows. The authors frame this as an agentic task (A-VRDU) and propose ALDEN, a multi-turn reinforcement learning framework that trains a VLM to explore documents actively. In addition to semantic search and answering, the agent has a fetch action that opens a page by its index, which helps with explicit page references and sequential reading. Training uses two stabilizing components. A rule-based cross-level reward combines turn-level evidence feedback with a token-level repetition penalty. A visual-semantic anchoring mechanism applies separate KL constraints to generated and visual tokens to prevent drift and collapse. The training corpus has 30k samples drawn from DUDE, MPDocVQA and SlideVQA, with trivial items filtered out and queries rewritten by LLMs. ALDEN achieves state-of-the-art accuracy on five long-document benchmarks while consuming fewer visual tokens. This shows that active navigation beats passive reading on both quality and cost.
Key points
- Action space: three actions,
search, fetch(direct access by page index) andanswer. The task is modeled as a hierarchical MDP, with turn-level action choice and token-level generation optimized jointly via PPO/GAE. - Training data: about 30k curated samples from DUDE, MPDocVQA and SlideVQA. Queries were rewritten to encourage multi-turn navigation and use of
fetch. - Accuracy: averaged across five VRDU benchmarks, ALDEN improves answer accuracy by 9.14% over the strongest baseline.
- Efficiency on LongDocURL: compared with MDocAgent, ALDEN saturates at top-3 retrieval. It exceeds the baseline's best setting by 3.2% accuracy while using roughly 3× fewer visual tokens.
- Stability and release: fully masking visual tokens in the policy gradient led to unstable training, which dual-path KL anchoring mitigates. Code, data, checkpoints and configs are to be released at github.com/gipplab/ALDEN (trained on A100 80GB GPUs).
