Reason Only When Needed: Efficient Generative Reward Modeling via Model-Internal Uncertainty
Paper · 2026 · Chao Xue, Yao Wang, Mengqiao Liu et al.
Summary
Generative reward models (GRMs) judge LLM outputs using chain-of-thought (CoT) reasoning. They have two weaknesses. They spend reasoning effort on every input, including easy ones. They also pick among sampled reasoning chains by voting, which cannot separate sound chains from ones that only look convincing. The authors propose E-GRM to fix both.
To decide whether CoT is needed, E-GRM samples the base model several times in parallel with different decoding settings. If the answers agree beyond a threshold τ, the prompt takes a short direct path. Otherwise, long reasoning is triggered. Because this signal comes from the model's own behaviour, no handcrafted difficulty features or task-specific cues are required.
Voting is replaced by a small auxiliary scorer that rates each reasoning chain individually. It is trained with a combination of Huber loss (for regression) and hinge loss (for ranking). Training also uses a GRPO variant adapted to paired preference data.
Across reasoning benchmarks, E-GRM lowers FLOPs and latency while improving accuracy. This suggests that agreement among a model's own outputs is a practical guide for allocating reasoning compute.
Key points
- Triggering strategies compared: On a held-out set of 500 arithmetic, logic and science problems, E-GRM reached 78.4% accuracy at 2.2 s average latency. AdaCoT scored 76.8% at 2.9 s, Forced-CoT 75.1% at 3.8 s, and a keyword rule-based trigger 70.5% at 2.1 s. Unlike AdaCoT and the rule-based method, E-GRM needs no task-specific heuristic.
- Component ablation (MATH, Qwen-Instruct-14B):
- The full system reached 78.4% accuracy at 15.7 TFLOPs and 2.2 s.
- Forcing CoT for all inputs dropped accuracy to 75.2% and raised cost by about 49% in FLOPs and 55% in latency.
- Replacing the scorer with majority voting caused the largest accuracy drop, to 72.8%.
- The base CoT-GRM reached only 69.1%.
- Preference optimization ablation: The paired-preference GRPO extension modestly beat standard GRPO on all three reported benchmarks: 78.4 vs 76.9 on MATH, 82.3 vs 81.5 on HelpSteer2, and 0.775 vs 0.765 on RMB Harmlessness.
- Error analysis: Manual inspection showed that voting often selects plausible but wrong reasoning paths. The hybrid-loss scorer is designed to prevent this failure.
- Limitations noted by the authors:
- Parallel decoding adds overhead, kept under 5% of latency.
- The threshold τ may need recalibration for new domains.
- The scorer may generalize poorly to unfamiliar reasoning styles.
- Memory and energy consumption were not evaluated.
