Bias Dynamics in BabyLMs: Towards a Compute-Efficient Sandbox for Democratising Pre-Training Debiasing
Paper · 2026 · Filip Trhlík, Andrew Caines and Paula Buttery
Summary
Studying how to prevent bias in language models during pre-training is rarely attempted, because retraining even a BERT-style model from scratch costs more than 500 GPU-hours. Most debiasing work therefore applies post-hoc fixes, which often hide bias rather than remove it. The authors ask whether BabyLMs could serve as cheap stand-ins for full-scale models in this research. BabyLMs are compact BERT-like models trained on the 100-million-word BabyLM corpus.
They score many BabyLMs and standard LMs with:
- Bias: a composite of CrowS-Pairs and StereoSet.
- Performance: a composite of BLiMP, the BabyLM BLiMP supplement and EWoK.
In both model families, bias rises with performance. BabyLMs also respond to intra-model and post-model debiasing much as BERT does. Using a low-cost LTG-BERT variant, the authors then run pre-model interventions on the corpus. These reproduce earlier findings and show that toxicity and gender imbalance drive bias formation.
The work matters because it brings pre-training debiasing experiments within reach of groups with modest compute.
Key points
- Bias tracks performance in both families. The Pearson correlation between composite performance and composite bias is 0.833 across 9 BabyLMs and 0.753 across 16 standard LMs.
- Two candidate models were chosen.
- LTG-BERT (ltg-bert-babylm) was trained for 1,500 epochs and costs roughly as much as BERT.
- LTG-Baseline (ltgbert-100m-2024) is the cheap option, reported at about 40 GPU-hours of training.
- The paper's headline claim is that the sandbox cuts pre-training cost from over 500 to under 30 GPU-hours.
- Replicated findings. Counterfactual Data Augmentation (CDA) lowers bias but can slow learning. Perturbation augmentation reduces bias more and does not hurt performance.
- New findings.
- Filtering toxic sentences from the corpus was directly tested against the resulting bias in a pre-training setting.
- Ablations show debiasing works mainly by tackling gender imbalance and toxicity, not through incidental changes to the corpus.
- These trends hold across random seeds.
- Limitations.
- All benchmarks are English-only and intrinsic.
- The approach covers masked LMs, not causal LLMs.
- Strategies found with BabyLMs still need confirmation on larger models.
