A Survey of Small Language Models

Paper · 2024 · Chien Van Nguyen, Xuan Shen, Ryan Aponte et al.

Summary

Large language models perform well but need heavy compute, memory and data, so they usually run on centralized, specialized hardware. This survey, which the authors present as the first focused on small language models (SLMs), reviews methods that try to preserve much of an LLM's accuracy or adaptability under limits such as device memory, latency, bandwidth, scarce data or energy. They note that "small" keeps shifting. GPT-2, considered large in 2019 at 1.5B parameters, exceeds many models discussed here. The field is organized along two axes:

  • Technique: architecture design, pre-training and fine-tuning, and post-hoc compression through pruning, quantization and knowledge distillation.
  • Constraint targeted: training compute, inference runtime, memory, storage, latency or dataset size.

The authors stress that improving one constraint can hurt another. For example, quantization-aware training saves memory but runs slower. The survey also covers benchmark datasets, evaluation metrics and applications. It closes with open problems: hallucination, bias, inference-time energy use and privacy. It is useful as a map for anyone selecting techniques for on-device or edge deployment.

Key points

  • Lightweight encoders: MobileBERT uses an inverted-bottleneck design and is 4.3x smaller and 5.5x faster than BERT-base. DistilBERT and TinyBERT are other distilled BERT variants.
  • Decoder-only SLMs:
    • BabyLLaMA (58M) and BabyLLaMA-2 (345M) use multi-teacher distillation and can beat their teachers when data is limited.
    • TinyLLaMA (1.1B) relies on FlashAttention.
    • MobiLlama (0.5B) uses parameter sharing.
    • MobileLLM adds embedding sharing, grouped-query attention and block-wise weight sharing.
  • Cheaper attention: Reformer uses LSH to reach O(N log N). Linear-complexity approaches include Longformer, low-rank and Nyström approximations, and kernel-based attention. Mamba and RWKV are recurrent-style alternatives.
  • Small multimodal models: LLaVA-Next, Idefics2 and InternVL2 build on compact LMs such as Gemma and phi-3-mini. PaliGemma and Mini-Gemini use lightweight vision encoders.
  • Open challenges:
    • Larger LLaMA models show more measured bias on RealToxicityPrompts (other bias benchmarks: BBQ, CrowS-Pairs, StereoSet).
    • On the MELODI benchmark, response length best predicts inference energy.
    • In Pythia models, the risk of training-data leakage grows faster than utility.
