FuseChat: Knowledge Fusion of Chat Models

Paper · 2025 · Fanqi Wan, Longguang Zhong, Ziyi Yang et al.

Summary

Building a strong chat LLM from scratch is expensive, and many existing models already have overlapping skills. The authors present FuseChat, a "fuse-and-merge" framework that combines several chat LLMs with different architectures and sizes into one compact model. In the first stage, one source model (OpenChat-3.5-7B) is the pivot. It undergoes pairwise knowledge fusion with each of the other source models through lightweight fine-tuning. This produces several target models that share the pivot's architecture. The training signal combines standard SFT with distribution matrices fused by MinCE. Because the source models use different tokenizers, a new statistics-based token alignment method (MS) maps their output distributions. In the second stage, the target models are merged in parameter space with SCE (Select, Calculate & Erase). SCE sets merging weights for each parameter matrix from the size of the fine-tuning updates and needs no extra training. The resulting FuseChat-7B rivals much larger models on instruction-following benchmarks. Adding a new source model is plug-and-play.

Key points

  • Six source models were fused: OpenChat-3.5-7B, Starling-LM-7B-alpha, NH2-SOLAR-10.7B, InternLM2-Chat-20B, Mixtral-8x7B-Instruct and Qwen-1.5-Chat-72B.
  • FuseChat-7B scores 17.16 on AlpacaEval 2.0 and 7.38 on MT-Bench. On MT-Bench this is roughly on par with Mixtral-8x7B-Instruct and close to GPT-3.5-Turbo-1106.
  • In the SCE ablation, dropping the select step reduces scores to 15.69 and 7.29. Using only the calculate step yields 16.62 and 7.11.
  • The MS token alignment consistently beats the EM and MinED alternatives. With Starling-LM-7B-alpha as pivot, the fused model improves by 17.62% on AlpacaEval 2.0 and 2.14% on MT-Bench.
  • Growing the fusion data from 10k to 95k examples raises the MT-Bench average from 7.10 to 7.38. The authors note that building the dataset takes considerable data engineering effort.
