LAD-RAG: Layout-aware Dynamic RAG for Visually-Rich Document Understanding
Paper · 2026 · Zhivar Sourati, Zheng Wang, Marianne Menglin Liu et al.
Summary
Retrieval-augmented generation over long, visually rich documents (slides, reports, papers) often fails on questions whose answers are spread across several pages. Standard pipelines embed chunks independently, discard layout and cross-page links, and fetch a fixed top-k regardless of the question. LAD-RAG addresses this in two stages. During ingestion, GPT-4o reads the document page by page and turns every visible element (paragraph, table, figure, header, footnote) into a node. Each node records type, position, content, visual attributes and a standalone summary. A running memory of sections, entities and pending references lets the model add edges for references, section membership and continuations across pages. The resulting graph is stored both as a symbolic object and as a vector index over node summaries. At inference, a GPT-4o agent chooses neural, graph-based or mixed search and repeats it until the evidence appears complete. On four benchmarks, the method usually recovers all required evidence and raises QA accuracy close to the oracle-evidence level with little added latency. This shows the value of modeling document structure for retrieval.
Key points
- Evaluation covers MMLongBench-Doc, LongDocURL, DUDE and MP-DocVQA. MP-DocVQA is entirely scanned, while DUDE mixes scanned and born-digital files.
- Perfect recall exceeds 90% on average without any top-k tuning. At comparable noise levels, recall is as much as 20% higher than that of baseline retrievers relying on text or images.
- Most computation happens offline at ingestion with a single model. Graph building relies on standard tooling with negligible overhead, and inference uses only lightweight text reasoning over the pre-built graph.
- In manual checks of dozens of documents, InternVL2-8B extracted content about as well as GPT-4o. The authors kept GPT-4o for its better instruction following and more structured output.
- Even with near-perfect evidence, current LVLMs do not fully exploit what is retrieved. The paper's scope is limited to retrieval, and robustness on low-quality scans remains an open question.
