SimpleDoc: Multi-Modal Document Understanding with Dual-Cue Page Retrieval and Iterative Refinement
Paper · 2025 · Chelsi Jain, Yiran Wu, Yifan Zeng et al.
Summary
SimpleDoc targets Document Visual Question Answering (DocVQA), where answers depend on long, multi-page documents mixing text, tables, charts and images. Earlier systems such as M3DocRAG and MDocAgent use visual page retrieval or elaborate multi-agent pipelines. The authors argue that a leaner design can make better use of current VLMs. Their framework has two phases. Offline, each page is turned into an image and indexed in two ways: a ColPali-style dense visual embedding and a brief VLM-written summary of three to five sentences. Online, a dual-cue retriever first shortlists pages by embedding similarity (MaxSim). A language model then reads only the summaries of those pages, discards irrelevant ones and re-ranks the remainder. A single VLM reasoning agent inspects the selected pages together with a working memory. If evidence is missing, it writes a refined query and triggers another retrieval round. Across four DocVQA benchmarks, SimpleDoc beats prior baselines by 3.2 points on average while looking at about 3.5 pages per question. This suggests that simple retrieval plus iterative reasoning can outperform heavier agent systems.
Key points
- Each page gets two representations: a visual embedding (ColQwen2.5 in the experiments) and a VLM-generated summary. Summary-based re-ranking lets the model decide how many pages to keep.
- On MMLongBench, removing summary re-ranking lowers QA accuracy from 59.55% to 54.80% and cuts retrieval F1 from 61.42% to 23.32%. It also produces more false-positive pages and hallucinated answers.
- Raising the embedding top-k from 2 to 30 improves accuracy from 56.66% to 60.58%. Average pages actually used grow only from 2.15 to 3.46.
- Additional refinement iterations raise accuracy from 58.62% to 59.55%, while query updates fall from 182 to 97.
- Text-oriented RAG methods adapted to DocVQA perform worse than DocVQA-specific systems, tested with Qwen2.5-VL-32B. Chain-of-Note reaches only 40.4%, and Plan∗RAG suffers from inaccurate query graphs.
