M-LongDoc: A Benchmark For Multimodal Super-Long Document Understanding And A Retrieval-Aware Tuning Framework

Paper · 2025 · Yew Ken Chia, Liying Cheng, Hou Pong Chan et al.

Summary

Question answering over real-world documents is difficult for large multimodal models. Such documents can run to hundreds of pages and mix text, figures and tables. Earlier benchmarks mostly used documents under 50 pages and short extractive answers.

The authors build M-LongDoc, a benchmark of 851 open-ended questions. The documents are recent research papers, company annual reports and product manuals, averaging over 200 pages each. Questions were drafted by a rotating set of strong multimodal models, then filtered by a checklist-based self-check and by human annotators. Answers are scored by several judge models that follow a detailed grading guide, so no reference answers are needed, and these scores agree closely with human ratings.

In testing, current models handled figure and table questions worse than text questions. They were also easily misled by irrelevant pages, even when retrieval was used. To address this, the authors propose retrieval-aware tuning: fine-tuning that deliberately includes distracting pages and modalities. It uses an automatically built training corpus and raises answer correctness by 4.6% (relative). Benchmark, corpus and code are public.

Key points

  • M-LongDoc composition:
    • 851 samples across academic (computer science only), financial and product domains.
    • Documents average about 210.8 pages and roughly 121K tokens.
    • Reference-style answers average about 180 words, far longer than in DocVQA, MMLongBench and similar benchmarks.
  • Contamination control and preprocessing:
    • Only documents published from January 2024 onward were used.
    • Text was extracted with PyMuPDF.
    • Figures and tables were cropped as images by an object detection model.
  • Question generation and filtering:
    • Claude 3.5, GPT-4o and Gemini 1.5 Pro wrote the questions, seeing the target page plus one neighbouring page on each side.
    • 80.1% of questions passed automated verification, and 80.9% of those passed human verification.
  • Retrieval-aware tuning:
    • Combines supervised fine-tuning with retrieval-augmented inputs containing distractors.
    • Trained on 10,070 automatically constructed question–explanation pairs.
    • Described as the first tuning method aimed at retrieval over long multimodal documents.
  • Scope and release:
    • Each question needs evidence from a single page only.
    • Documents are distributed as download links to respect copyright.
