MMLU-CF: A Contamination-free Multi-task Language Understanding Benchmark

Paper · 2025 · Qihao Zhao, Yangyu Huang, Tengchao Lv et al.

Summary

Popular multiple-choice benchmarks such as MMLU are public, and LLM training corpora are huge. As a result, models may have already seen the test items, which makes their scores unreliable. The authors show this directly: given only an MMLU question, some models reproduce the original answer options word for word. MMLU-CF is a replacement benchmark built to resist two kinds of leakage.

  • Accidental (unintentional) contamination: questions come from a much wider pool of web documents. A five-stage pipeline (collection, cleaning, difficulty sampling, LLM-based checking and decontamination) rewrites items under three rules, so that memorizing the original wording no longer helps.
  • Intentional (deliberate) contamination: the data is split into two halves with matching difficulty and subject distributions. The test half stays private, and the validation half is released for transparency.

More than 40 LLMs were evaluated. Scores are clearly lower than on MMLU, and model rankings change noticeably. In future, the gap between validation and test results can serve as a signal of contamination. This gives researchers a fairer, reproducible, one-time measure of world-knowledge understanding.

Key points

  • Source material: 200+ billion web documents, from which 2.7 million raw MCQs were extracted across 3,000+ website domains and 14 fields (e.g., Health, Math, Law, Computer Science).
  • Final benchmark: 20,000 questions, split into a 10,000-item closed test set and a 10,000-item public validation set (on GitHub and Hugging Face as microsoft/MMLU-CF).
  • In the 5-shot test, GPT-4o leads with an average of 73.42%. Qwen2.5-72B scores 71.60% and Phi-4-14B scores 67.68%.
  • Computer Science is the hardest discipline and also the largest share of the test set (13.1%), followed by Health (12.2%) and History (11.5%).
  • Ablations of the rewriting rules hurt scores more on MMLU than on MMLU-CF, with weaker models (GPT-3.5-Turbo, Llama-3-8b) affected most. Test-set scores can be requested by submitting Hugging Face model IDs or API access.
