ToolRL: Reward is All Tool Learning Needs

Paper · 2025 · Cheng Qian, Emre Can Acikgoz, Qi He et al.

Summary

Teaching LLMs to call external tools usually relies on supervised fine-tuning (SFT) over pre-generated trajectories. Such models often copy surface patterns and transfer poorly to new or complicated tool scenarios. The authors examine how to build reinforcement-learning rewards for general-purpose tool selection and invocation, where an answer can involve several tools and many parameters. They split the reward into a format component and a correctness component. Correctness gives partial credit for matching the tool name, the parameter names and the parameter values. They then compare variants that differ in reward type, scale, granularity and how the reward changes over training. Training uses GRPO from scratch ("cold start") on Qwen2.5 and Llama-3.2 instruct models. The resulting models beat the base models by about 17% and SFT models by about 15% on tool-use and QA benchmarks. They also generalize to unseen tasks and show proactive and metacognitive behavior. The study gives practical guidance on reward shaping for agentic LLMs. Code and data are public.

Key points

  • Models tested include Qwen2.5-1.5B/3B/7B-Instruct and Llama-3.2-3B-Instruct. Evaluation covers BFCL (V3), API-Bank and Bamboogle. Repository: github.com/qiancheng0/ToolRL.
  • GRPO Cold Start outperformed SFT400, SFT4K, SFT400+PPO, SFT400+GRPO and PPO Cold Start. It reached a BFCL accuracy of 52.98% for Qwen2.5-3B-Instruct and 44.10% for Llama-3.2-3B-Instruct.
  • Making the reward coarser hurt results. For Qwen2.5-1.5B-Instruct, BFCL accuracy fell from 46.20% with the original fine-grained reward to 36.72% with a single all-or-nothing match on the whole tool set.
  • Reward scale works best when it shifts gradually from format toward correctness as training progresses. An abrupt two-stage switch lowered performance.
  • Rewarding longer reasoning traces did not help and could degrade tool-use accuracy.
