FireAct: Toward Language Agent Fine-tuning

Paper · 2023 · Baian Chen, Chang Shu, Ehsan Shareghi et al.

Summary

Most language agents that combine reasoning with tool use rely on few-shot prompting of general-purpose LMs. These models were not built for agentic work, so they tend to be weak and brittle unless a costly model such as GPT-4 is used. The authors study the largely unexplored alternative of fine-tuning the backbone LM. Their setup is open-domain QA where the agent can query a Google search API. GPT-4 produces solution trajectories using ReAct, CoT and Reflexion prompting on several datasets. Only the successful trajectories are kept, and they are converted into a single ReAct format. These are then used to fine-tune smaller models such as GPT-3.5 and Llama2. This recipe is called FireAct. Across models, data mixes and tasks, fine-tuned agents consistently beat their prompted counterparts. They are also faster and more resistant to noisy tool output. Mixing methods and tasks in the training data brings further gains. The work matters because it shows that compact, cheaper, reproducible agents are feasible. It also releases code, data and checkpoints and lays out open questions for the field.

Key points

  • On HotpotQA, prompted GPT-3.5 reaches 31.4 EM. Fine-tuning on 500 ReAct trajectories lifts this to 39.2, and a ReAct + CoT mix lifts it further to 41.0.
  • Llama2-7B fine-tuned on 500 GPT-4 trajectories improves HotpotQA EM by 77%. Overall, fine-tuning cuts inference time about 4x and improves results by 64% when tool outputs are distracting.
  • With fewer than 500 training samples, GPT-3.5 clearly outperforms open-source models, but the gap narrows as more data is added. Different LMs benefit from different method mix ratios.
  • Training tasks include HotpotQA, StrategyQA and MMLU. Adding a dissimilar task did not help other tasks but did not harm them either, which suggests that multi-task agent backbones are viable.
  • During inference, the fine-tuned model needs no few-shot examples and implicitly selects a strategy. For example, it can answer simple questions in one round without searching. Resources are available at fireact-agent.github.io.
