A Survey of Reinforcement Learning from Human Feedback

Paper · 2023 · Timo Kaufmann, Paul Weng, Viktor Bengs et al.

Summary

Hand-crafting reward functions for reinforcement learning is hard. Success is often vague, sparse signals slow learning, and shaped rewards invite reward hacking. This survey by Kaufmann, Weng, Bengs and Hüllermeier, published in TMLR, reviews reinforcement learning from human feedback (RLHF) as an alternative. In RLHF, a reward model is learned from human judgments and then used to train a policy. The authors place RLHF within its predecessor, preference-based RL (PbRL), and bring up to date the most recent review of similar scope (Wirth et al., 2017).

The survey's main contribution is a structured overview. It classifies feedback types by attributes such as arity, involvement and granularity, then covers label collection and active query selection, reward model training, policy learning (including bandit framings and direct policy optimization), theory, and benchmarks and datasets. Coverage is broad across domains, with the most depth in control and robotics. A separate appendix addresses LLM fine-tuning.

The resulting map of design choices helps researchers working across application domains, including LLM alignment.

Key points

  • Why not inverse RL alone: The authors argue that interactive feedback is easier for humans to give than demonstrations. It also does not require experts to perform near-optimally and can capture behavior people actually want from a machine. Demonstrations, by contrast, rarely identify rewards robustly.
  • Feedback taxonomy: Feedback types are described along six attributes: arity, involvement, intent, explicitness, granularity and abstraction. One example is the similarity query (Bobu et al., 2023), which asks a human to compare an anchor trajectory against two alternatives.
  • Combining feedback types: The survey identifies three strategies:
    • an initialize-then-refine pipeline, e.g., demonstrations followed by pairwise comparisons (Ibarz et al., 2018);
    • a primary feedback type paired with a cheap supplementary signal;
    • a blend of several primary types.
  • Application domains covered: LLM fine-tuning, image generation, music generation, continuous control, games and robotics.
  • Methodological trends surveyed:
    • active learning and query synthesis;
    • psychology-informed labeling;
    • meta-learning for transferring preferences;
    • data augmentation and semi-supervised learning;
    • Nash learning from human feedback.
