A Comprehensive Survey on Long Context Language Modeling

Paper · 2025 · Jiaheng Liu, Dawei Zhu, Zhiqi Bai et al.

Summary

Language models that can read very long inputs, such as whole books, extended dialogues or large codebases, are now common. The methods behind them, however, are spread across many separate research threads. This survey comes from a large team at NJU, PKU, CASIA, Alibaba, ByteDance, Tencent, Kuaishou and M-A-P. It organizes that literature around three questions:

  • How to build capable and efficient long context language models (LCLMs).
  • How to train and serve them at reasonable cost.
  • How to evaluate and interpret them.

The first part covers data work for pre-training and post-training, position embeddings and ways to extrapolate them, and attention variants. It also covers workflows that extend a single model, including prompt compression, memory, RAG and agents. The second part reviews infrastructure, from I/O and GPU memory optimizations to quantization, prefill/decode disaggregation and speculative decoding. The third part discusses benchmarks for comprehension and long-form generation, along with behavioral and mechanistic analyses. The paper proposes no new model. Its value is a structured map of the field plus a maintained paper list, which is useful when choosing techniques for long-document projects.

Key points

  • The survey traces context windows growing from 4K to 128K, 1M and even 10M tokens. The authors argue that this headroom enables test-time scaling, such as o1-like long reasoning, inside a single context.
  • The architecture taxonomy has four groups:
    • Position embeddings (RoPE, Alibi, XPOS) and extrapolation methods (NTK, YaRN, LongRoPE).
    • Transformer-based designs (Longformer, NSA, GQA).
    • Linear-complexity models (Mamba, RetNet, lightning attention).
    • Hybrid models (Jamba, Samba, Minimax-01).
  • Data resources are grouped by training stage:
    • Pre-training filtering: Longwanjuan and LongAttn.
    • Pre-training synthesis: ICP, SPLICE and Quest.
    • Post-training: GATEAU, Ziya-Reader and ChatQA2.
  • The analysis sections address several issues:
    • Advertised context length often exceeds what models actually use well.
    • Long-context perplexity may not predict real task performance.
    • Models favor information at the beginning and end of the input.
    • Mechanistic work has identified specific "retrieval heads".
  • The future directions are long reasoning, larger windows, efficient architectures and deployment, more reliable evaluation, and mechanistic interpretability. The companion GitHub repository is LCLM-Horizon (arXiv:2503.17407v2, Nov 2025).
