OpenCoder: The Open Cookbook for Top-Tier Code Large Language Models
Paper · 2025 · Siming Huang, Tianhao Cheng, Jason Klein Liu et al.
Summary
Most open code LLMs publish only their weights. Their training data, cleaning pipelines and training recipes stay hidden, which makes it hard for researchers to reproduce results or build strong baselines. OpenCoder addresses this gap. It is a code LLM family released with everything needed to rebuild it: weights, inference code, the pretraining corpus, the full data-processing pipeline, synthetic and SFT data, ablation studies, training protocols and intermediate checkpoints.
The core resource is RefineCode, a pretraining corpus of GitHub code, The Stack v2 and code-related web text recalled from Common Crawl and similar sources. It was cleaned with heuristic rules adapted to each programming language. Pretraining ends with an annealing phase on high-quality algorithmic and synthetic data, followed by two-stage supervised fine-tuning.
OpenCoder-8B beats earlier fully open models and is competitive with weights-only industrial models at the 6B+ scale. Controlled experiments isolate the choices that drive this result, so the work serves as a practical recipe for others training code models.
Key points
- RefineCode corpus: about 960B tokens across 607 programming languages, including roughly 75B tokens of code-related web data. It uses over 130 filtering rules, including language-specific ones that The Stack v1/v2 lack.
- Benchmark results: OpenCoder-8B base scores 64.6 zero-shot pass@1 on HumanEval, ahead of Qwen2.5-Coder-7B at 61.6. It was trained on about 2.5T tokens, and the chat model reaches 83 on HumanEval.
- Ablation findings:
- File-level deduplication beats repository-level deduplication.
- Filtering by GitHub stars reduces data diversity and yields worse results.
- High-quality data in the annealing phase gives clear gains.
- Annealing and SFT data:
- The annealing mix includes an Algorithmic Corpus (12.44B tokens), synthetic code snippets (2.71B) and LLM-generated code textbooks (0.91B).
- SFT uses about 3.5M examples.
- Two-stage SFT (broad data first, then code-focused data) outperforms mixed training, e.g. HumanEval 72.5 vs 55.5.
- Limitations: the authors did not try model-based filtering, add general natural-language data, or apply RLHF.
