Baichuan-Audio: A Unified Framework for End-to-End Speech Interaction
Paper · 2025 · Tianpeng Li, Jun Liu, Tao Zhang et al.
Summary
Cascaded voice assistants chain ASR, an LLM and TTS. This adds latency, compounds errors and discards paralinguistic cues. End-to-end alternatives such as Moshi and GLM-4-Voice tend to lose reasoning ability once speech is added. Baichuan-Audio is a 7B end-to-end audio LLM for real-time bilingual (Chinese/English) spoken dialogue. It has three parts:
- Baichuan-Audio-Tokenizer: Whisper Large Encoder features are downsampled to 12.5 Hz and quantized with an 8-layer RVQ. Training is multi-objective, so tokens carry both meaning and sound detail.
- LLM backbone: it alternates text and audio tokens, so the text guides the speech. A separate audio head handles the audio tokens.
- Decoder: a flow-matching decoder plus a vocoder turns the tokens back into a waveform.
Pre-training used about 100B audio-text tokens drawn from an 887k-hour corpus, with interleaved data. It ran in two stages: audio embeddings and the audio head were trained first, which helps preserve the base model's language skills. The model matches or beats similar-sized open models on Chinese ASR and spoken QA, and clearly outperforms GLM-4-Voice in speech-to-speech mode. The code, model, training data and the OpenAudioBench benchmark are all released.
Key points
- The tokenizer runs at 12.5 Hz with an 8-layer RVQ whose codebook sizes shrink from 8K to 4K, 2K, then 1K for the last five layers. The reconstruction loss combines L1/L2 terms with a multi-scale Mel loss.
- Baichuan-Audio-Base reaches 3.2% WER on Fleurs test-zh, ahead of Qwen2-Audio-Base (4.3%) and Whisper-large-v3 (12.4%). On WenetSpeech it gets 7.2% on test_net and 8.5% on test_meeting, where Qwen2-Audio-Base is slightly better at 7.7%. It is also evaluated on KeSpeech dialects and on Covost2 translation (BLEU).
- OpenAudioBench covers Reasoning QA, Llama Questions, Web Questions, TriviaQA and AlpacaEval (199 items). Answers are judged by GPT-4o.
- In speech-to-text mode, the model scores 77.4 on AlpacaEval.
- In speech-to-speech mode, it beats GLM-4-Voice by 11.4 points on Reasoning QA (37.9 vs 26.5) and by 20.7 points on AlpacaEval (69.6 vs 48.9).
