What is the Role of Small Models in the LLM Era: A Survey

Paper · 2024 · Lihu Chen and Gael Varoquaux

Summary

LLMs keep getting bigger, which raises compute, energy, and deployment costs. Many labs, smaller companies, and edge applications cannot afford this. Chen and Varoquaux argue that small models (SMs) are undervalued and still widely used. To show this, they cite HuggingFace download statistics, where compact models draw most monthly requests. The survey treats "small" as relative to a reference model rather than a fixed parameter cutoff. It compares LLMs and SMs on four axes: accuracy, generality, efficiency, and interpretability. It then organises the literature around two relationships:

  • Collaboration: SMs help LLMs at each lifecycle stage (data curation, reasoning support, faster inference, evaluation), and LLMs train SMs through distillation.
  • Competition/complementarity: specialised or interpretable small models can be the better choice for certain tasks.

The authors conclude that the two model types fill different niches, such as low latency, on-device use, and low-resource settings, and are increasingly cooperating. For resource-constrained teams, the survey offers a practical map for deciding when a small model is sufficient or preferable.

Key points

  • Download evidence: HuggingFace NLP models are grouped into five size bins. The top model in each bin is all-MiniLM-L6-v2 (23M), xlm-roberta-base (279M), Qwen3-0.6B, Qwen2.5-1.5B-Instruct, and Qwen3-8B. Smaller bins show very high monthly downloads.
  • Relative definition of "small": BERT (110M) is small next to LLaMA-8B, which is small next to GPT-4. Most models discussed in the survey have fewer than 1B parameters.
  • Collaboration taxonomy:
    • SMs enhance LLMs through data curation, weak-to-strong supervision, RAG, model cascading/routing, speculative decoding, and small evaluators.
    • LLMs enhance SMs through knowledge distillation: full data synthesis, rationale distillation, data augmentation, and representation distillation.
  • Open challenges: the capability and robustness gap of SMs, collaboration across open, heterogeneous model pools (beyond RouteLLM), trustworthy small judges, and agentic small models. On the last point, the paper cites a Cisco forecast that about 68% of customer-service interactions will be handled by agentic systems by 2028.
