A Survey on Data Selection for Language Models

Paper · 2024 · Alon Albalak, Yanai Elazar, Sang Michael Xie et al.

Summary

Large language models depend on huge web-scale corpora, but using every available document is often wasteful or harmful because text quality varies widely. Research on choosing training data has grown quickly, yet practical know-how sits mostly inside a few well-funded labs that rarely publish their pipelines. This survey organizes that scattered literature. The authors propose a single conceptual framework in which every selection method has two parts: a utility function that scores data, and a selection mechanism that decides how a scored item is used. They organize methods by training stage, with pretraining as the main focus, followed by instruction-tuning, alignment, in-context learning, task-specific fine-tuning, and non-language domains. Along the way they summarize current best practices, point out where the literature has gaps, and suggest research directions. The work is a reference rather than an empirical study. Its value lies in giving newcomers and smaller groups a shared vocabulary and a map of the field.

Key points

  • Five objectives: The survey lists five goals of data selection: better model performance, data efficiency, efficient selection, evaluation integrity (test-set decontamination), and less bias and toxicity.
  • Four taxonomy axes: The taxonomy varies along distribution matching vs. diversification, changes to the whole dataset vs. a single data point, binary vs. natural-number output, and training stage.
  • Scale of Common Crawl: It holds roughly 250 billion pages (about 11 PB) collected since 2008, and 3–5 billion new pages are added each month.
  • Lack of benchmarks: Apart from the BabyLM Loose track, no benchmarks exist for data selection in language. DataComp and DataPerf are cited as models to follow.
  • Cost of experiments: Training a 1B-parameter model on 50B tokens takes about 5 days on 8 A100 GPUs with GPT-NeoX.
  • Future directions: The authors suggest shifting compute from training to data processing, using cheap utility proxies such as n-gram hashing, and developing "additive" selection, where a model infills or enriches text instead of only removing it.
