Unified Demonstration Retriever for In-Context Learning
Summary
In-context learning (ICL) lets a language model solve a task from a few input-output examples placed in its prompt, but its accuracy depends heavily on which examples are chosen. Earlier retrieval methods either used generic tools such as BM25 or Sentence-BERT, which ignore task supervision, or trained a separate retriever per task with hand-designed signals, which is costly to store and hard to extend. The authors propose UDR, one shared retriever for many tasks. It is a DPR-style bi-encoder that adds a short task instruction to every example. Signals from all tasks are converted into one format: candidate demonstrations are ordered by how much they raise an LM's likelihood of the correct output. The retriever learns this ordering with a LambdaRank-inspired pairwise loss plus in-batch negatives. An iterative loop then uses the retriever itself to find better positives and hard negatives across the full training set. On more than 30 tasks from 13 families, UDR beats the baselines. It remains robust with LMs from 1.3B to 175B parameters and on unseen datasets. A single compact model can therefore replace many task-specific retrievers.
Key points
- Architecture: The query and demonstration encoders are Transformers with CLS pooling, initialized from "BERT base uncased" as in EPR. Each input is concatenated with a task instruction, for example a summarization prompt for CNN/DailyMail.
- Unified signal: For generation tasks, a candidate's score is the LM's likelihood of the gold output. For classification and multi-choice tasks, this likelihood is normalized over the label set or answer choices.
- Training details:
- Each pair of candidates is weighted by the difference of their reciprocal ranks.
- Each batch comes from a single task.
- Tasks are sampled from a multinomial distribution tempered by a hyper-parameter α, which reduces bias toward high-resource datasets.
- Contrast with EPR: EPR relies on binary positive/negative labels and a manually restricted candidate pool. UDR instead uses list-wise ranking and mines candidates from the entire dataset.
- Resources and limitations: Code and checkpoint are released at github.com/KaiLv69/UDR. The authors note three limitations:
- Only a BERT-base initialization was tested.
- The retriever is a black box.
- Candidates are scored one at a time during training, although several are combined at inference.
