Astraios: Parameter-Efficient Instruction Tuning Code Large Language Models

Paper · 2024 · Terry Yue Zhuo, Armel Zebaze, Nitchakarn Suppattarachai et al.

Summary

Updating every weight of a code LLM during instruction tuning becomes costly as models grow. Parameter-efficient fine-tuning (PEFT) is the usual workaround, but it was unclear which PEFT technique gives the best value at each model size. Astraios tackles this with a suite of 28 OctoCoder-style models. It uses StarCoder bases of 1B, 3B, 7B and 16B parameters, each instruction-tuned on CommitPackFT+OASST from OctoPack with either full fine-tuning (FFT) or one of six PEFT methods. The models are tested on code comprehension and generation across 5 tasks and 8 datasets, on robustness to perturbed prompts, and on the security of the code they produce. FFT wins at every scale, while the ranking of PEFT methods shifts with model size. LoRA usually strikes the best cost/quality balance. Larger models write better code but are less robust and produce insecure code more often. Held-out instruction-tuning loss tracks downstream scores, and method rankings observed on small models carry over to larger ones, which makes choosing a tuning recipe cheaper.

Key points

  • The PEFT methods compared are LoRA, P-Tuning, (IA)3, Adapter H, Adapter P and Parallel Adapter, all run through the Hugging Face PEFT library and LLM-Adapters. Training was short: 200 steps at 2048-token sequences, with 8-bit quantized bases for the PEFT runs.
  • Trainable parameter shares differ by orders of magnitude. (IA)3 updates about 0.01–0.02% of weights, LoRA about 0.11–0.31%, and Adapter H about 1.6–4.2%.
  • Evaluation covered several benchmarks:
    • BigCloneBench (F1) and Devign (accuracy) from CodeXGLUE, with 2,000 sampled examples each.
    • HumanEvalPack synthesis, repair and explanation in Python and Java, scored with Pass@1.
    • Robustness and code-security tests, including the "Asleep At The Keyboard" benchmark.
  • Results depend on scale. At 16B, Parallel Adapter and LoRA come closest to FFT. At 1B, P-Tuning and (IA)3 edge ahead of them.
  • Scale helps generation tasks but not clone or defect detection. Test loss predicts mean task performance better than train loss.
