NVIDIA Nemotron Nano 2: An Accurate and Efficient Hybrid Mamba-Transformer Reasoning Model

Paper · 2025 · NVIDIA: Aarti Basant, Abhijit Khairnar, Abhijit Paithankar et al.

Summary

Reasoning models spend most of their compute producing long chains of thought. In standard Transformers, the attention KV cache makes such long generations slow and memory-hungry. NVIDIA addresses this with Nemotron-Nano-9B-v2, which uses the Nemotron-H hybrid design: most self-attention layers are replaced by Mamba-2 layers. The team first pre-trained a 12B parent, Nemotron-Nano-12B-v2-Base, on 20T tokens in FP8 with a Warmup-Stable-Decay schedule. The data mix combined refreshed Common Crawl, a new math extraction pipeline, filtered GitHub code and synthetic STEM and SFT-style data. Context was then extended to 128k. Alignment used several SFT stages plus GRPO, DPO and RLHF on about 90B tokens. Some reasoning traces were deliberately truncated so users can cap the model's thinking budget. Finally, Minitron-style pruning and distillation shrank the model so 128k-token inference fits on a single A10G GPU (22 GiB, bfloat16). The result matches or beats Qwen3-8B on reasoning benchmarks while generating 3–6× faster in long-output settings. The work shows that hybrid SSM–attention models are practical for low-cost reasoning, and it openly releases checkpoints and most of the training data.

Key points

  • Architecture: The 12B base has 62 layers: 28 Mamba-2, 28 FFN and only 6 self-attention layers (about 8%). It uses hidden size 5120, GQA with 40 query and 8 KV heads, squared ReLU, and no position embeddings. The pruned 9B model shrinks the FFN width from 20,480 to 15,680, among other reductions.

  • Speed and accuracy: Throughput is up to 6.3× higher than Qwen3-8B at 8k input / 16k output tokens, measured on one A10G in bfloat16. Accuracy is on par or better on AIME24/25, GPQA-D, LiveCodeBench, BFCLv3, IFBench and RULER 128k.

  • Released models: NVIDIA-Nemotron-Nano-9B-v2, NVIDIA-Nemotron-Nano-9B-v2-Base and NVIDIA-Nemotron-Nano-12B-v2-Base, all on Hugging Face.

  • Released data: Nemotron-Pre-Training-Dataset-v1 (over 6T tokens) includes:

    • Nemotron-CC-v2 (8 new Common Crawl snapshots from 2024–2025, plus synthetic Q&A translated into 15 languages);
    • Nemotron-CC-Math-v1 (133B tokens, built with lynx rendering and Phi-4 LaTeX cleanup, with a 52B-token "4+" subset);
    • Nemotron-Pretraining-Code-v1;
    • Nemotron-Pretraining-SFT-v1.

    Nemotron-Post-Training-Dataset-v2 adds SFT and RL data in Spanish, French, German, Italian and Japanese.

  • Relevance for Ukrainian projects: The 15 multilingual pre-training languages include Russian and Polish but not Ukrainian. Multilingual web data was filtered only with heuristics, since no model-based quality classifiers were available for these languages.
