Nemotron-H: A Family of Accurate and Efficient Hybrid Mamba-Transformer Models
Paper · 2025 · NVIDIA: Aaron Blakeman, Aarti Basant, Abhinav Khattar et al.
Summary
Self-attention costs grow with sequence length, both in compute per generated token and in KV-cache memory. This makes inference expensive for reasoning models that improve by generating long outputs. NVIDIA's Nemotron-H addresses this with hybrid Mamba-Transformer models at 8B and 56B parameters. Only about 8% of the layers are self-attention, spread evenly through the network. The rest alternate between Mamba-2 and FFN layers, and Mamba-2 needs constant compute and memory per token. The models were pre-trained on up to 20 trillion tokens of curated and synthetic data, including a reworked English Common Crawl pipeline. The 56B model was trained end to end with an FP8 recipe. A new pruning-and-distillation method, MiniPuzzle, derived a 47B variant from it. Accuracy matched or exceeded comparable open Transformers such as Qwen-2.5 and Llama-3.1, with up to 3× higher inference throughput. The work shows that hybrid architectures can compete at the frontier while making long-generation inference cheaper. FP8 training and MiniPuzzle also reduce the cost of building such models.
Key points
- Architecture: Nemotron-H-8B has 52 layers, of which 4 are attention. Nemotron-H-56B has 118 layers, of which 10 are attention. Neither uses position embeddings. Both use GQA with 8 KV heads and squared ReLU FFNs. A pure-Transformer baseline, Nemotron-T-8B, was trained on identical data for comparison.
- Benchmarks and speed: Nemotron-H-56B-Base beat Llama-3.1-70B on 16 of 17 evaluated tasks. Throughput was up to 3× higher on H100 GPUs with 65,536 input tokens and 1,024 output tokens.
- Web data: The Common Crawl corpus contains 6.3T tokens, split into 4.4T deduplicated real tokens and 1.9T rephrased synthetic tokens. Documents were bucketed by an ensemble of three quality classifiers. Its high-quality subset gave +5.6 MMLU over DCLM.
- FP8 training: The recipe uses per-tensor current scaling and keeps the first and last 4 GEMMs in BF16. In 8B ablations up to 15T tokens, it matched or beat BF16 accuracy.
- MiniPuzzle and releases: MiniPuzzle produced Nemotron-H-47B-Base using only 63B tokens. It is about 20% faster than the 56B model and fits in FP4 on one RTX 5090 with 32GiB. The 8B, 47B and 56B base checkpoints are released on Hugging Face and NGC in NeMo format, along with 8B and 47B Reasoning variants.
