Scaling Latent Reasoning via Looped Language Models
Paper · 2025 · Rui-Jie Zhu, Zixuan Wang, Kai Hua et al.
Summary
Most large language models learn to reason through explicit chain-of-thought added after pre-training. This lengthens outputs and makes little use of pre-training data. The authors propose Ouro, a family of Looped Language Models (LoopLM) in which a stack of weight-tied layers is applied several times, so hidden states are refined step by step in latent space. A gate at each recurrent step predicts when to stop. Training combines an entropy-regularized objective, using a uniform prior over exit steps, with a later stage that tunes the balance between compute and quality, so easier inputs can exit early. Models with 1.4B and 2.6B parameters were pre-trained on 7.7T tokens. With four recurrent steps, they perform on par with standard transformers two to three times their size across general, math and science benchmarks. Synthetic experiments suggest the advantage comes from better use of stored facts, not from storing more of them. The work frames loop depth as a third scaling axis next to parameters and data, which matters for deployment on limited hardware.
Key points
- Ouro 1.4B and 2.6B (4 recurrent steps, 7.7T training tokens) roughly match 4B and 8B dense transformers such as Qwen3 and Gemma3. This is about a 2–3× gain in parameter efficiency. Models are released at ouro-llm.github.io.
- The Ouro-Thinking variants were evaluated against Qwen3 and DeepSeek-Distill models on AIME24/25, OlympiadBench, BeyondAIME, GPQA, SuperGPQA and HLE. The 2.6B variant equals or beats 8B baselines on several of these.
- Physics-of-LMs-style probes show both looped and non-looped models store about 2 bits of knowledge per parameter. Looping clearly helps on fact composition and multi-hop reasoning.
- Harmfulness on HEx-PHI decreases as the number of recurrent steps grows, even beyond the trained depth. Latent reasoning traces agree with final answers more closely than explicit CoT does.
- Deployment work includes KV cache sharing strategies and inference support in vLLM and SGLang.
