100 Days After DeepSeek-R1: A Survey on Replication Studies and More Directions for Reasoning Language Models

Paper · 2025 · Chong Zhang, Yue Deng, Xiang Lin et al.

Summary

DeepSeek-R1 showed that explicit step-by-step reasoning can be trained into language models cheaply. However, DeepSeek did not publish full recipes, training data or configurations for DeepSeek-R1-Zero, DeepSeek-R1 or the distilled models. This survey collects the open replication efforts that appeared in the roughly 100 days after that release and compares them along the two training stages R1 relies on.

For supervised fine-tuning (SFT), the authors examine:

  • how reasoning datasets are built (question collection, deduplication, rejection sampling, answer verification, difficulty and diversity filtering),
  • token-length distributions, contamination risks and overlaps between datasets.

For reinforcement learning from verifiable rewards (RLVR), they review:

  • data curation, reward design and sampling strategies,
  • the many PPO/GRPO variants, which they place within one shared theoretical framing that explains each modification and its motivation.

From the reported experiments they derive practical recommendations. The survey closes with open directions: process rewards, preference optimization, generalization, overthinking, safety, and multimodal and multilingual reasoning. It serves as a map for teams building their own RLMs.

Key points

  • SFT resources compared include OpenThoughts-114k, OpenR1-Math-220k, Light-R1-SFT, Bespoke-Stratos-17k, SYNTHETIC-1, s1K-1.1 and LIMO, together with the models trained on them (OpenThinker, OpenR1-Qwen-7B, s1.1, among others).
  • RL data curation is reviewed for Open-Reasoner-Zero, LIMR, DeepScaleR, Skywork-OR1, DAPO and DeepCoder.
  • Algorithms covered:
    • PPO, GRPO and Dr. GRPO;
    • DAPO, VAPO, VC-PPO and CPPO;
    • REINFORCE, REINFORCE++, the Kimi REINFORCE variant and GPG.
  • The RLVR analysis looks at training-data recipes, model size and type, context length, reward modeling and the role of the KL loss.
  • Alternatives to outcome-reward RL are discussed:
    • process-reward methods, such as PRIME and rStar-Math;
    • DPO-style preference optimization, such as DPO-R1, DPO-VP and RedStar.
