Audio-Reasoner: Improving Reasoning Capability in Large Audio Language Models

Paper · 2025 · Xie Zhifei, Mingbao Lin, Zihang Liu et al.

Summary

Large audio language models such as Qwen2-Audio and SALMONN rarely use chain-of-thought (CoT) reasoning at scale. Earlier attempts gave little benefit on complex questions, and the authors blame this mainly on audio corpora like AudioSet, AudioCaps and Clotho, whose labels are short and shallow. To fix this, they built CoTA, a corpus of about 1.2 million reasoning-heavy samples. They collected diverse multi-task audio data with simple labels, then used closed-source commercial models to re-annotate it, generate question–answer pairs and write structured CoT traces. Qwen2-Audio was fine-tuned on CoTA to produce Audio-Reasoner. The model reasons in four explicit stages (planning, captioning, step-by-step reasoning, summary) before giving its answer, and its traces can exceed 1K tokens within a 4K context. Audio-Reasoner clearly outperforms Qwen2-Audio-Instruct and reaches state-of-the-art results on MMAU-mini, AIR-Bench and MELD. This suggests that reasoning-rich training data, rather than zero-shot prompting, is what makes CoT useful for audio. The model, data and code are publicly released.

Key points

  • CoTA corpus: about 1.2M samples (refined captions, QA pairs and structured CoT), produced by a scalable pipeline driven by commercial models. Released on GitHub (xzf-thu/Audio-Reasoner) and Hugging Face (zhifeixie/Audio-Reasoner-CoTA).
  • Gains over Qwen2-Audio-Instruct:
    • MMAU-mini: roughly +25.4% (the conclusion states +25.04%).
    • AIR-Bench chat/foundation: +14.57% / +10.13%.
    • MELD emotion recognition: +8.01%.
    • The CoVoST2 zh-en improvement is reported inconsistently (+30.6% vs. +8.31%).
  • Training setup: the base model is Qwen2-Audio, trained with a likelihood objective on the reasoning trace plus the final answer, using a structured Planning → Caption → Reasoning → Summary format.
  • Error analysis on MMAU-mini failures:
    • 49% perceptual errors (mis-hearing, segmentation).
    • 40% knowledge errors.
    • Only 3% pure reasoning slips.
  • Further results and limitations: the model also scores best among LALMs on the newer MMAR benchmark. The authors note that multi-turn dialogue, robustness to noise and cross-modal (visual) reasoning remain untested.
