Coreferential Reasoning Learning for Language Representation
Paper · 2020 · Deming Ye, Yankai Lin, Jiaju Du et al.
Summary
Pre-trained encoders like BERT learn mostly local cues from masked-token recovery. As a result, they struggle with links that span sentences, especially coreference. Fine-tuning on the small supervised coreference datasets available did not help downstream tasks, and large annotated sets are impractical to build. The authors therefore propose CorefBERT, which learns coreference from unlabeled text through a new pre-training task, Mention Reference Prediction (MRP).
MRP relies on a distant-supervision heuristic: nouns repeated within a passage are assumed to co-refer. One occurrence is masked, and the model must recover it by copying a token from the surrounding context rather than predicting from the whole vocabulary. MRP is combined with standard MLM, and NSP is dropped.
CorefBERT was evaluated on extractive QA, relation extraction, fact verification and coreference resolution. It beats vanilla BERT on nearly all of these benchmarks and also improves RoBERTa. On GLUE it stays on par with BERT.
This shows that coreference-aware pre-training can be added without hurting general language understanding.
Key points
- Masking setup: MRP masks repeated nouns found with a POS tagger. MLM and MRP masks are sampled at a 4:1 ratio, with 15% of tokens masked overall, following BERT.
- Ablation on QUOREF: dev F1 rose from 67.3 (BERT BASE) to 72.3 (CorefBERT BASE). The copy-based objective alone added +2.3 F1 on top of mention reference masking.
- Other ablation findings: removing NSP helped on most tasks. Mention reference masking performed about as well as whole word masking.
- GLUE averages: 79.6 vs 79.6 for the BASE models, and 82.2 vs 81.9 in favour of CorefBERT LARGE.
- Sentence-level coreference: CorefBERT clearly beats BERT-LM and roughly matches WikiCREM.
