Double Graph Based Reasoning for Document-level Relation Extraction

Paper · 2020 · Shuang Zeng, Runxin Xu, Baobao Chang et al.

Summary

The paper addresses document-level relation extraction, where the entities in a relation often occur in different sentences, appear several times under different mentions, and may be linked only through intermediate facts. The authors analyzed errors of a BiLSTM baseline on DocRED and found that most failures came from cross-sentence and reasoning-dependent cases. In response, they introduce GAIN (Graph Aggregation-and-Inference Network), which uses two graphs. The first is a heterogeneous Mention-level Graph (MG). It contains mention nodes plus one document node that serves as a hub, and a GCN runs over it to produce mention representations informed by the whole document. The second is an Entity-level Graph (EG), built by averaging the mentions of each entity. On the EG, an attention-weighted path reasoning mechanism combines evidence from two-hop paths through intermediate entities. On DocRED, GAIN beats the previous state of the art by 2.85 F1. The largest gains are on inter-sentence and inferential relations. This shows that explicit graph-based reasoning helps extract facts that span whole documents.

Key points

  • Error study: in 100 DocRED dev documents (1,150 errors from the BiLSTM of Yao et al., 2019), 53.5% of errors involved inter-sentence relations and 21.0% required logical reasoning.
  • MG has three edge types:
    • intra-entity edges, which connect all mentions of the same entity;
    • inter-entity edges, which link mentions of different entities that share a sentence;
    • document edges, which connect every mention to the document node, so any two mentions are at most two hops apart.
  • The GCN outputs from all layers are concatenated to form each node's final representation. The encoder input combines word, entity-type and coreference embeddings, and the encoder can be an LSTM or BERT (GAIN-BERT).
  • The path reasoning step considers two-hop paths, with the entity pair acting as the attention query. Unlike Christopoulou et al. (2019), it needs no walk-based iterative inference or the extra hyperparameter tuning that comes with it.
  • Code is released at github.com/PKUnlp-icler/GAIN. The approach was published at EMNLP 2020 by Zeng, Xu, Chang and Li (Peking University and ByteDance AI Lab).
