PairSpanBERT: An Enhanced Language Model for Bridging Resolution
Paper · 2023 · Hideo Kobayashi, Yufang Hou and Vincent Ng
Summary
Bridging resolution means finding anaphors that relate to an earlier entity through a non-identity link, such as part-whole or attribute, and connecting them to that antecedent. Annotated data for this task is scarce. The authors take SpanBERT and continue pre-training it with its original objectives (MLM and SBO) plus a new objective, ANO. ANO trains the model to recognise the kinds of surrounding text where an unstated relation holds between a pair of mentions. The training signal comes from large amounts of noisy, automatically labelled text, built from noun pairs found in two ways: heuristically through syntactic structures, and by distant supervision from ConceptNet. The resulting model, PairSpanBERT, replaces SpanBERT inside an existing multi-task resolver. That resolver jointly handles coreference and bridging and can add precision-weighted predictions from a rule-based resolver. Evaluation covers ISNotes, BASHI and ARRAU RST, both end-to-end from raw text and with gold mentions. The new encoder gives the best published results on all three datasets in both settings. The work shows that a pre-training task tailored to the target task can pay off even when the automatic labels are noisy.
Key points
- PairSpanBERT achieves state-of-the-art bridging results on ISNotes, BASHI and ARRAU RST, in both the end-to-end and gold-mention settings. The authors present this as the first end-to-end bridging evaluation on ARRAU RST.
- On the dev set, combining noun pairs from syntactic structures and from ConceptNet always beat using either source alone.
- Control experiment: SpanBERT was pre-trained further with MLM and SBO alone for the same number of epochs. Its scores barely changed, so the gains come from ANO rather than from extra training.
- Error analysis of the best end-to-end models:
- Anaphor recognition recall stays low, between 25.6% and 39.5%.
- Definite NPs are missed more often than other anaphors (31% vs 45% recall on ISNotes).
- Many false positives are new mentions wrongly labelled as bridging (43% of precision errors on ISNotes, 71% on ARRAU RST).
- Comparison with the previous best system:
- On ISNotes, recognition recall rises from 31.6% to 39.5%, with gains mainly on bare NPs.
- On BASHI, recognition precision rises from 36.0% to 43.0%.
- The checkpoint is published on Hugging Face as utd/pairspanbert.
Interesting ideas
- I1. Design a pre-training objective that mirrors the downstream task (here, implicit links between mention pairs), then feed it large volumes of cheap, noisy labels instead of small clean ones.
- I2. Run a matched control by giving the baseline the same amount of extra training without the new objective, so the improvement can be credited to the objective rather than to compute.
- I3. Add a rule's measured precision on training data, scaled by a tuned weight, to the neural pair score. Rules then shift the ranking softly instead of overriding it.
- I4. Use a knowledge graph (ConceptNet) as distant supervision for which noun pairs are likely to be implicitly related, such as an object and its parts or attributes.
- I5. Break errors down by mention form (definite vs bare NP, new vs old mentions) and evaluate both end-to-end and with gold mentions to see where the pipeline really fails.
For Mova
How these ideas could serve Mova, our small open language model — its files, stages and tests:
- I1 (learn): Silver data agreed by witness parsers could fuel an auxiliary objective that matches the target stage, such as relations between noun pairs, rather than generic training.
- I2 (learn): Evaluations with negative controls should include an equal-budget run like this before any new training signal is credited with a gain.
- I3 (frames): Coreference and bridging candidates could combine learned scores with precision-weighted rule votes, keeping each link's justification traceable to a named rule.
- I4 (world): Compiled WordNet/Wikidata relations could propose part-whole or attribute links between text entities, so that "the prices" attaches to previously mentioned goods.
- I5 (frames): Anaphora and bridging errors in prag could be reported by NP type and by input setting, to separate mention-detection failures from linking failures.
