Compressing Language Models for Specialized Domains
Paper · 2026 · Miles Williams, George Chrysostomou, Vitor Amancio Jeronymo et al.
Summary
General-purpose compression of large language models through pruning or quantization tends to keep scores on broad benchmarks. It can still hurt accuracy in specialized fields such as biomedicine or law. The earlier domain-aware approach, D-Pruner, depends on costly full-parameter fine-tuning. The authors propose MixCal, a post-training calibration technique for Hessian-based compressors.
Instead of computing the layer Hessian from generic data alone, MixCal blends activations from an in-domain dataset and a generic one into a single matrix, weighted by a coefficient α. The resulting Hessian therefore also captures cross-dataset interactions. Because each update processes a pair of examples at once, calibration also becomes cheaper.
Combined with SparseGPT, MixCal improves in-domain results over Wanda, plain SparseGPT and D-Pruner while largely keeping general ability. It works in both English and Chinese. This makes it practical to derive lean, domain-focused models from general LMs without retraining.
Key points
- Method: mixed activations are formed as Z = √α·X_d + √(1−α)·X_g, and the Hessian is computed as H = 2ZᵀZ. Compared with a plain weighted sum of Hessians, this adds a cross term. The method is algorithm-agnostic: the main experiments use SparseGPT, and the appendix also reports GPTQ-M.
- Perplexity at 50% unstructured sparsity (averaged over models):
- Biomedical: 16.4 with generic SparseGPT, 15.1 after adding in-domain data, and 14.4 with MixCal.
- Legal: 7.2, then 6.7 with in-domain data; MixCal stays at 6.7.
- Chinese experiments: the model is Yi 1.5 6B, evaluated on CMB (biomedical) and CAIL2018 (legal), with mC4 as the generic calibration data.
- Biomedical relative accuracy: MixCal 85.6%, SparseGPT 70.0%, D-Pruner 79.6%.
- Legal relative accuracy: MixCal 90.1%, SparseGPT 47.1%, D-Pruner 76.2%.
- Models and limitations: the models mentioned include Llama 3.2 3B, Llama 3.1 8B, Yi 1.5 6B and Mistral NeMo 12B. D-Pruner comparisons cover only the Llama-architecture models.
