Efficient Methods for Natural Language Processing: A Survey

Paper · 2023 · Marcos Treviso, Ji-Ung Lee, Tianchu Ji et al.

Summary

Much of the recent progress in NLP comes from making models and training corpora larger. That strategy also drives up the need for data, compute time, storage and energy, which are finite and unequally available. This TACL 2023 survey by Treviso, Lee, Ji and 19 co-authors grew out of Dagstuhl Seminar 22,232. It organizes the research on getting similar results with fewer resources.

The authors do not treat efficiency as a single quantity. Instead, they follow the NLP pipeline stage by stage: data, model design, pre-training, fine-tuning, inference, hardware, measuring efficiency, and model selection. They present a typology of methods and close each section with open problems.

The paper releases no new dataset or model. Its contribution is a structured map of the field, with practical advice for teams on tight budgets and directions for researchers building new efficient techniques. A central conclusion is that most gains so far come from model design tailored to particular budgets and hardware. The authors also stress that efficiency has several definitions and no single metric captures it.

Key points

  • The survey builds on the Schwartz et al. (2020a) view of cost, Cost(R) ∝ E·D·H. The three factors are per-example cost, dataset size, and the number of hyperparameter-tuning runs. The survey organizes its material by pipeline stage rather than by these factors.
  • Data:
    • Removing duplicates (e.g., MinhashLSH, used when building OPT) can match or beat training on all the data.
    • Mishra and Sachdeva used adversarial filtering to find roughly 2% of SNLI that performs comparably to the full corpus.
    • Other data-side methods covered are active learning, curriculum learning, and data-quality tools such as dataset cartography.
  • Architecture: On Long Range Arena, S4 and Mega clearly outperform attention-based models. Compared with a standard transformer, they train about 5x faster and use about 15% less memory.
  • Model selection: The survey reviews Bayesian optimization, SHA/ASHA, the SMAC3 library (integrated into auto-sklearn and auto-pytorch), and μTransfer, which tunes a small model and reuses its hyperparameters for a larger one.
  • Open issues:
    • Compression can trade efficiency against fairness and robustness.
    • Unstructured sparsity reduces FLOPs but may raise memory needs for storing indices.
    • Fixing the tuning budget is suggested as a way to make model comparisons fairer.
