VL-Rethinker: Incentivizing Self-Reflection of Vision-Language Models with Reinforcement Learning
Paper · 2025 · Haozhe Wang, Chao Qu, Zuming Huang et al.
Summary
Reasoning-focused "slow-thinking" systems such as OpenAI-o1 clearly beat fast models on text math, but on visual math benchmarks they do little better than strong vision-language models like Qwen2.5-VL-72B. The authors try to close this gap with reinforcement learning alone, without distilling reasoning traces from a teacher. They train Qwen2.5-VL models on a curated set of 38,870 multimodal queries using GRPO with a binary correctness reward.
They add two changes. First, Selective Sample Replay (SSR) re-inserts earlier samples that had large advantage values into new batches. This addresses "vanishing advantages", where groups whose answers are all right or all wrong give zero gradient. Second, Forced Rethinking appends a reflection trigger to rollouts during training, so the model learns to check and revise its answers.
The resulting VL-Rethinker reaches state-of-the-art results on MathVista and MathVerse and leads open-source models on broader benchmarks. This suggests that lightweight RL-only pipelines can build reflective multimodal reasoners.
Key points
- Training data consists of 38,870 diverse vision-language queries. The reward is binary (1 for a correct answer, 0 otherwise), following DeepSeek-R1.
- For Qwen2.5-VL-72B, the share of queries with non-zero advantage fell from about 40% to under 20% within 256 steps. SSR is designed to counter this collapse.
- VL-Rethinker-72B scores 80.4% on MathVista and 63.5% on MathVerse. This compares with 73.9% and 57.0% for OpenAI-o1.
- The model sets an open-source state of the art on MathVision, MMMU-Pro, EMMA and MEGA-Bench, though it still trails human experts on EMMA and MEGA-Bench.
- At 7B, training with rethinking improves MathVision by 8.46% relative to the baseline, versus only 2.49% when rethinking is merely forced at test time. The trained model also triggers rethinking adaptively, at different rates across benchmarks.
