VisualWebInstruct: Scaling up Multimodal Instruction Data through Web Search

Paper · 2025 · Yiming Jia, Jiachen Li, Xiang Yue et al.

Summary

Vision-language models handle perception tasks well but lag on multi-step reasoning, largely because little diverse, reasoning-oriented multimodal training data exists. The authors build VisualWebInstruct by mining the web rather than annotating by hand. About 30K seed images from mathematics, physics, chemistry, accounting and other subjects are submitted to Google Image Search (Google Lens) to find pages with similar visuals. These pages are converted into accessibility trees. Gemini 1.5 Flash then pulls out and screens QA pairs, and GPT-4o produces several candidate answers that are checked for agreement and compared with the original web solutions. The final dataset has roughly 906K QA pairs, about 40% of them image-based, and cost around $10.8K to build. Fine-tuning MAmmoTH-VL on this data produces MAmmoTH-VL2, a 7B model. It reports the strongest results known to the authors among SFT-only models under 10B parameters on several reasoning benchmarks. The work shows that commercial search engines can serve as a cheap, scalable source of multimodal instruction data.

Key points

  • The seed images come from K12 forums (42.4%), geometry problems (33.3%), the MMMU dev split (21.2%) and reference materials (3.1%). Search returned 1,747,634 URLs, which filtering and deduplication reduced to 758,490 unique ones.
  • Stage 1 extracted 421,320 raw QA pairs, of which 361,015 (85.7%) were judged valid. Stage 2 used GPT-4o to generate four answers per question for consistency filtering.
  • The final resource contains about 906K QA pairs, including roughly 347K visual ones covering 163,743 unique images. Mathematics accounts for 62.5% of the content, while biology makes up only 1.4%.
  • MAmmoTH-VL2 scores 40.7 on MMMU-Pro, 42.6 on MathVerse, 55.7 on DynaMath and 64.5 on MMVet. Fine-tuning on the dataset adds about 10–20 points over Llava-OV and about 5 points over MAmmoTH-VL.
  • The authors report 0% benchmark contamination. They note that the pipeline depends on proprietary tools (Google Search, Gemini, GPT-4o), which limits reproducibility.
