R1-Onevision: Advancing Generalized Multimodal Reasoning through Cross-Modal Formalization
Paper · 2025 · Yi Yang, Xiaoxuan He, Hongkun Pan et al.
Summary
Vision-language models often see an image correctly but reason about it shallowly. Text-only reasoners like Deepseek-R1 reason well but fail when the image caption they receive is incomplete. R1-Onevision addresses this gap with a cross-modal pipeline that first converts images into formal textual descriptions. Language-based step-by-step reasoning then runs on top of those descriptions. With role-playing generation, the authors used this pipeline to build the R1-Onevision dataset, which contains step-by-step reasoning traces over natural scenes, charts, mathematical expressions and science content. A Qwen2.5-VL base model is post-trained in two stages:
- supervised fine-tuning to learn coherent reasoning patterns and output structure;
- rule-based reinforcement learning to improve generalization.
The authors also release R1-Onevision-Bench, an evaluation set organized by educational stage and school subject. They report state-of-the-art results against GPT-4o and Qwen2.5-VL on several math-heavy multimodal benchmarks. Ablations indicate that SFT and RL complement each other and that the recipe also works at 3B scale. The work matters because it offers an open recipe of data, training and benchmark for joining perception with deep multimodal reasoning.
Key points
- Data pipeline: images are formalized into text, and reasoning annotations are produced with a role-playing strategy, yielding the R1-Onevision dataset across several visual domains.
- Training: two-stage post-training of Qwen2.5-VL, consisting of SFT followed by rule-based RL. Ablations suggest SFT lays the foundation and RL strengthens reasoning further.
- R1-Onevision-Bench:
- spans exam levels starting at junior high school and extending through university and higher;
- covers mathematics, physics, chemistry, biology and logical deduction.
- Other evaluation benchmarks: MathVision, MathVerse, MathVista and WeMath.
- 3B ablation (Qwen2.5-VL-3B → R1-Onevision-3B):
- MathVision 21.7 → 23.7 (the text reports 23.6);
- MathVerse 34.7 → 38.6;
- MathVerse Vision Only 31.2 → 35.5.
