Training Verifier to Assessing Complex Real-World Tool-Use Trajectories

Paper · 2026 · Linzhuang Sun, Mingyang Chen, Hao Liang et al.

Summary

LLM agents that handle multi-turn customer-service style tasks need training dialogues that reflect real user–agent collaboration. Such data is rare, so synthetic generation is common. Checking the quality of synthetic trajectories is difficult, and existing pipelines such as APIGen-MT build their filtering into the generation process, which makes them hard to reproduce or move to new domains. The authors separate verification from synthesis.

First, they create tasks from τ-bench user, order and product tables using a persona-driven "user profile tree." Simulated users with traits such as impatience or vagueness then talk with an agent LLM. Each resulting trajectory is labelled by two checks:

  • Outcome check: the database state produced by the agent's tool calls is hash-compared with the state produced by the gold action list.
  • Process check: an LLM committee reviews the dialogue turn by turn.

These labels train Tool-Verifier-7B, a standalone filter that can be plugged into other pipelines. The verifier beats GPT-4o and Qwen2.5-72B-Instruct on a new human-validated benchmark. Data cleaned with it also yields better downstream results than APIGen-MT, which makes quality control for tool-use data cheaper and easier to reuse.

Key points

  • Resources released:
    • Tool-Verifier-7B, the verification model.
    • Tool-V-Bench, 165 human-validated trajectories of varying complexity.
    • Tool-Verify, a curated set of 3,295 samples.
  • Labelling rule: a trajectory counts as positive only if both checks pass. It counts as negative only if both fail.
  • Ablation results (Table 3):
    • The full verifier reaches 77.58% accuracy, 68.25% precision, 71.67% recall and 69.98 F1.
    • Removing the outcome check cuts precision to 36.36%.
    • Removing the process check drops F1 to 30.20.
  • Case study: Qwen2.5-72B-Instruct approved an order modification that the agent made without explicit user confirmation. Tool-Verifier correctly flagged this as a policy violation.
