A Systematic Survey of Automatic Prompt Optimization Techniques
Paper · 2025 · Kiran Ramnath, Kang Zhou, Sheng Guan et al.
Summary
Large language models react unpredictably to small changes in prompt wording, ordering or formatting. Manual prompt engineering is therefore laborious and quickly becomes outdated as models change. This survey by an Amazon Web Services team reviews black-box Automatic Prompt Optimization (APO): methods that improve prompts without access to model parameters and keep the resulting edits readable by humans. The authors define APO formally as searching for the prompt template that maximizes the expected value of a task metric on a validation set. Because the discrete token search space is combinatorial, practical systems only approximate this objective. The authors then propose a unifying five-stage framework:
- seed prompt initialization,
- inference evaluation and feedback,
- candidate generation,
- filtering and retention of candidates,
- iteration depth.
Each stage is broken into finer design choices, and the surveyed methods are classified accordingly in comparison tables. The paper ends with open problems and research directions. This makes it a practical map for choosing or designing a prompt optimizer.
Key points
- Taxonomy: The five-part structure (Fig. 1) has subcategories at each stage:
- Feedback: accuracy, reward-model, entropy and NLL scores, LLM feedback, and human feedback.
- Candidate generation: genetic algorithms, RL, metaprompt design, mixture of experts and program synthesis.
- Search: TopK greedy, UCB variants and region-based joint search.
- Methods mapped: ProTeGi, APE, OPRO, DSPY, CRISPO, MOP, GATE, TextGrad, PromptAgent and SCULPT are among the works placed in the framework. The full comparison appears in Tables 2–4 of the appendix.
- Data and theory: APE found that a few hundred labeled samples are enough for optimization. AlignPro gives an upper bound on gains from discrete prompt optimization, while no lower bound has yet been established.
- Scalability gap: Optimizing system prompts with SPRIG took about 60 hours, compared with roughly 10 minutes per task for ProTeGi.
- Open challenges:
- task-agnostic APO without a known task or eval set,
- poorly understood mechanisms, such as uninterpretable "evil twin" prompts and gibberish delimiters,
- APO for agents,
- joint multimodal prompt optimization.
