Black-Box Prompt Optimization: Aligning Large Language Models without Model Training
Paper · 2024 · Jiale Cheng, Xiao Liu, Kehan Zheng et al.
Summary
Aligning LLMs with user intent usually requires extra training, such as RLHF with PPO or DPO. That training is expensive in GPU compute and impossible for closed, API-only systems like GPT-4 or Claude-2. Cheng et al. leave the model untouched and rewrite the user's input instead. Their Black-Box Prompt Optimization (BPO) starts from open preference datasets in which each prompt has a preferred and a rejected answer. An LLM explains why one answer wins, then revises the prompt so that it explicitly asks for those winning qualities. The resulting 14K original/improved prompt pairs train a sequence-to-sequence "prompt preference optimizer" that can sit in front of any model. In pairwise evaluations, BPO raised ChatGPT's win rate against its unmodified version by about 22% and GPT-4's by about 10%. It also beat PPO and DPO on Vicuna models and added further gains when stacked on top of them. Because the changes are readable text, this approach is more interpretable than weight-based alignment, which makes it useful for anyone relying on proprietary LLMs.
Key points
- Training data comes from OASST1, HH-RLHF, Chatbot Arena Conversations and Alpaca-GPT4. These yielded 14K optimized prompt pairs, and code and data are released at github.com/thu-coai/BPO.
- BPO is model-agnostic and needs no training of the target LLM. Win-rate gains ranged from 8.8% to 22.0% across gpt-3.5-turbo, gpt-4, claude-2, llama-2-chat and vicuna.
- On Vicuna models, BPO outperformed both PPO and DPO and gave complementary improvements when combined with them. It also beat simply prompting an LLM to act as a prompt engineer, which shows the value of preference feedback.
- Evaluation used Vicuna Eval, Self-Instruct Eval, a sampled Dolly Eval and BPO-test Eval. A manual review of 500 outputs identified four main rewriting strategies: explanation generation, prompt elaboration, providing hints and safety enhancement.
- The authors report three limitations: the training data is small, the optimizer handles long-context inputs poorly (for example, it alters passages meant for summarization), and it does not help on math problems.
