Evaluating Numeracy of Language Models as a Natural Language Inference Task
Paper · 2025 · Rahmad Mahendra, Damiano Spina, Lawrence Cavedon et al.
Summary
Benchmarks for numerical reasoning in language models focus mostly on solving math exam questions. Real tasks such as fact-checking instead need a model to judge whether a sentence with numbers is consistent with its context. The authors recast basic numeracy as natural language inference: given a premise and a hypothesis, a model labels the pair as entailment, contradiction or neutral. The benchmark has over 28k English sentence pairs covering three skills: Basic Arithmetic, Number Comparison and Number Normalization (digits vs. words, units of measure). The data combines cleaned existing NLI data, math word problem corpora converted to NLI, and new pairs generated from templates and formulas, all built as minimal pairs. They test 49 open-source models from 17 families in zero-shot mode: NLI-fine-tuned encoders, instruction-tuned LLMs and math-specialised LLMs. Large models clearly win only on arithmetic. Math pre-training does not carry over to comparison or normalization. Most models handle entailment far better than contradiction or neutral. This shows that solving math problems is not the same as understanding numbers in text.
Key points
- The benchmark is released at github.com/rmahendra/numeracyNLI and has more than 28k premise–hypothesis pairs.
- Each task has subtasks:
- Number Comparison splits into quantifier-based and comparative reasoning.
- Number Normalization splits into numeration and measurement conversion.
- The sources are:
- AWP-NLI from EQUATE, manually cleaned of wrong labels and incomplete hypotheses.
- Multi-Arith, ASDiv, SVAMP, Wiki-Convert and UMWP.
- The numerical stress test set of Naik et al. was examined but dropped.
- Most models stay below an F1 of 0.75 on the majority of arithmetic and comparison tasks. Smaller fine-tuned PLMs match LLMs on comparison and normalization, and instruction tuning improves numeracy.
- Several factors hurt performance:
- Larger numbers: F1 drops steadily as number magnitude grows, with DeBERTa-v3 the only outlier on large numbers.
- Distracting numbers: premises with irrelevant numbers confuse models.
- Unverifiable claims: models do poorly at spotting when the context is insufficient (neutral cases).
Interesting ideas
- I1. Turning a math word problem into several minimally different hypotheses (correct result, wrong result, result made unverifiable by removing a quantity) tests whether a system actually computes rather than pattern-matches.
- I2. The neutral label, where information is missing, gets its own category, because models tend to hallucinate an answer instead of noticing that it cannot be verified.
- I3. Formula-based augmentation regenerates the same problem with numbers of different magnitudes, isolating the effect of number size from language.
- I4. Measurement normalization treats unit identity and conversion as an inference question, for example 40 mm against 4 cm, or kilograms against grams.
- I5. The paper states openly how it labels a monotonic case: "2 hours" against "three hours" counts as contradiction, not entailment.
For Mova
How these ideas could serve Mova, our small open language model — its files, stages and tests:
- I1 (answer): Word-problem readers could be checked against the full E/C/N triple for each problem, so that a correct answer reached by luck is exposed.
- I2 (world): The world of the text could explicitly mark quantities as unknown when a premise says "more dimes", letting the reader answer "cannot be determined" instead of guessing.
- I3 (learn): Magnitude-swapped copies of test items make a cheap control set, showing whether a component's accuracy depends on small, frequent numbers.
- I4 (world): The compiled measures layer could normalize quantities to canonical units, so that equality and contradiction between values become explicit, explainable checks.
- I5 (frames): When the frames layer reads bare numbers as exact or as "at least", it should record that reading choice explicitly so downstream inferences stay consistent and explainable.
