Representing Numbers in NLP: a Survey and a Vision
Paper · 2021 · Avijit Thawani, Jay Pujara, Filip Ilievski et al.
Summary
This survey addresses a gap in NLP: most systems handle numbers poorly. They either drop numbers during preprocessing, collapse them into UNK tokens, or let BPE/WordPiece break them into arbitrary pieces. Neuroscience, by contrast, suggests the brain processes quantities differently from words. The authors propose the first NLP-oriented taxonomy of numeracy. It splits the vague notion of "numeracy" into seven subtasks along two axes: exact vs approximate granularity, and abstract vs grounded units. They map existing benchmarks and downstream uses onto this grid. They also review more than a dozen published number encoders and decoders, comparing their design choices. From this analysis they derive practical guidance and a research agenda. Their main conclusion is that standard subword tokenization with lookup embeddings is a weak way to represent numbers. Open questions remain about how specific representations should be, what range of numbers they should cover, and how much inductive bias they need. The work matters because numbers are pervasive in scientific, financial and everyday text.
Key points
- The seven tasks are:
- Exact/abstract: simple arithmetic.
- Exact/grounded: arithmetic word problems and exact facts.
- Approximate/abstract: numeration and magnitude comparison.
- Approximate/grounded: measurement estimation and numerical language modeling.
- On the DROP benchmark, BERT does about five times worse when the answer is a number rather than a text span. Simply switching to char-level tokenization (GenBERT) or scientific notation already helps.
- English Wikipedia's roughly 6 million pages contain over 150 million numbers.
- The survey catalogues these resources:
- Commonsense number facts: Numbergame, NumerSense.
- Measurement estimation: VerbPhysics, DoQ, MC-TACO.
- Numeric paraphrase generation: NumGen.
- Representations are framed as a trade-off between inductive bias and data-driven variance. Value embeddings and DICE sit at the bias end, while default BERT sits at the variance end. Coverage of the number range is a separate design decision.
