Lost in Literalism: How Supervised Training Shapes Translationese in LLMs
Paper · 2025 · Yafu Li, Ronghao Zhang, Zhilin Wang et al.
Summary
LLMs learn from huge amounts of native text, yet their translations often still sound overly literal. The authors examine this "translationese" in LLM-based machine translation and trace it to supervised fine-tuning (SFT). Professional translators marked literal or unnatural spans in English-Chinese and German-English document translations produced by both translation-specialized and general-purpose LLMs. These annotations were summarized as a Translationese Span Ratio (TSR). Every model showed substantial translationese. When the same models were asked to refine their own outputs, the results were much more natural. Model perplexity also tracked the human judgments, so it can serve as an automatic way to detect translationese. Annotation of widely used SFT corpora showed that many training references are themselves literal. The authors propose two fixes: having an LLM polish the gold references, and using a pre-trained LLM to filter out unnatural training pairs. Both fixes improve naturalness on Llama-3.1-8B and Qwen-2.5-7B, according to human and automatic evaluation. This matters because it shows that translation naturalness depends heavily on how SFT data is curated.
Key points
- Evaluation data: 200 English source documents (50 each from CNN, Arxiv, Wikipedia, Quora) and 100 German documents (Focus news, Quora). The systems tested were GPT-3.5-Turbo, GPT-4-Turbo, ALMA-7B-R, ALMA-13B-R and Mistral-7B-Instruct-v0.3.
- Prevalence: Even GPT-4 showed strong translationese in more than 40% of its translations. Over 34% of sampled SFT training instances were also judged to contain translationese.
- Filtering: Naturalness kept rising as the most unnatural references were discarded, up to a removal rate of 40%. A 20% cut improved both naturalness and quality, while heavier filtering hurt both.
- Other languages: SFT-Polished was extended to English→German, Russian, Czech and Icelandic using ALMA data. Perplexity fell by 7.6 on average (56.5→40.0 for En-De, p < 0.01), and translation quality also improved.
