Mitigating Visual Forgetting via Take-along Visual Conditioning for Multi-modal Long CoT Reasoning
Paper · 2025 · Hai-Long Sun, Zhun Sun, Houwen Peng et al.
Summary
The paper addresses "visual forgetting" in multimodal LLMs that produce long chain-of-thought answers. As reasoning gets longer, these models attend less to the input image and rely more on their own earlier text, which can lock in mistakes. The authors measured this with QVQ-72B-Preview. They cut reasoning at eight points, reset the KV cache to drop the image, and let the model finish from text alone. They also inspected layer-level and token-level attention. Halfway through reasoning, removing the image barely changed accuracy, which showed that later steps depend mostly on text. To counter this, they propose Take-along Visual Conditioning (TVC). During training, Dynamic Visual Reaffirmation (DVR) builds supervised fine-tuning data in which the image is re-injected midway through reasoning. At inference, PVC re-presents the image at key reasoning stages. Re-inserted visual tokens are compressed with pooling to keep this cheap. A TVC model built on Qwen2-VL-7B reaches state-of-the-art average results on five math reasoning benchmarks. This shows that keeping images "in view" improves visually grounded multi-step reasoning.
Key points
- MathVista-Hard diagnostic. The authors built this subset by removing the 30.9% of MathVista questions that the model can solve without the image. Normal reasoning scores 43.1. Dropping the image at the midpoint (k=4 of K=8) gives 40.9, a gap of only about 2.2 points. Removing it early costs about 20 points.
- Attention decay. Attention to image tokens drops sharply after roughly the first 20% of generated tokens. The performance loss from masking falls off roughly exponentially with cutoff position.
- Method components. TVC combines DVR (training) with PVC (inference). The ablation shows both contribute about equally, and plain SFT without DVR gives only limited gains.
- Efficiency and accuracy. Compressing visual tokens with 4×4 average pooling speeds up inference and slightly improves accuracy over the uncompressed TVC baseline.
- Results, scaling and limitations. TVC beats the previous state of the art by 3.4 points on average across five benchmarks. Accuracy keeps rising as SFT data grows from 50K to 200K samples. The authors note that the approach is unsuitable for real-time settings and that extra image revisits cannot fix weak core reasoning.
