Making Text Embedders Few-Shot Learners
Paper · 2024 · Chaofan Li, MingHao Qin, Shitao Xiao et al.
Summary
LLM-based text embedders perform well on tasks they were trained on, but they often fail to follow unfamiliar instructions or handle complex retrieval, because training covers only a narrow range of instructions. The authors address this with the in-context learning ability of decoder-only LLMs. During contrastive training and at inference, a few task demonstrations (instruction, query, response) are placed before the query, while passages are encoded without them. The resulting model, bge-en-icl, uses the final-layer [EOS] hidden state as the embedding and is trained with an InfoNCE objective using in-batch and hard negatives. The authors also test bidirectional attention, alternative pooling and passage-side prompts. They find that the plain causal LLM setup with few-shot examples works best. The model sets new state-of-the-art results on MTEB and AIR-Bench, and its checkpoint, data and training scripts are openly released. This matters because it shows that embedders can adapt to new tasks through examples instead of extra fine-tuning.
Key points
- Input format: each demonstration follows a template of the form ⟨Instruct⟩ task definition ⟨query⟩ … ⟨response⟩ …. The examples are added only on the query side.
- Training setup: contrastive training with InfoNCE and temperature-scaled cosine similarity, with τ fixed at 0.02.
- Architecture comparison: complex changes such as bidirectional attention or mean pooling did not help in the ICL setting. The original architecture gave the best results.
- Additional releases: bge-multilingual-gemma2 and the reranker bge-reranker-v2.5-gemma2-lightweight, which also serves as a distillation teacher. On BEIR, reranking the top-100 results from bge-large-en-v1.5 raises the mean from 54.31 to 63.67. A variant that saves 60% of FLOPs still reaches 63.10.
- Multilingual reranking: on MIRACL dev, reranking bge-m3 (Dense) output raises the mean nDCG@10 over 18 languages from 69.2 to 77.3. The FLOP-saving variant scores 77.1. Code and models are available in the FlagEmbedding GitHub repository.
