Distilling LLM Agent into Small Models with Retrieval and Code Tools
Paper · 2025 · Minki Kang, Jongwon Jeong, Seanie Lee et al.
Summary
Small language models (sLMs) trained to imitate a large teacher's chain-of-thought (CoT) traces often fail on questions that need rare facts or exact arithmetic. They tend to hallucinate because they cannot store or compute everything internally. Kang et al. propose Agent Distillation. Instead of copying static rationales, the student learns full reason–act–observe trajectories from a CodeAct-style LLM agent that can call a retrieval tool and execute code.
The authors add two techniques:
- First-thought prefix: a prompting trick that improves the quality of the teacher's trajectories without any extra fine-tuning.
- Self-consistent action generation: at inference, the student samples several candidate actions and keeps one that runs correctly and gives a consistent result.
A Qwen2.5-32B-Instruct teacher is distilled into Qwen2.5-Instruct students from 0.5B to 7B. They are tested on eight factual and math benchmarks, covering both in-domain and out-of-domain settings. Distilled agents at 0.5B, 1.5B and 3B roughly match CoT-distilled models one size larger. This suggests that tool use is a practical way to make compact models more capable.
Key points
- Benchmarks: factual tasks are HotpotQA, Bamboogle, MuSiQue and 2WikiMultiHopQA; math tasks are MATH, GSM-Hard, AIME and OlymMATH. Each domain has one in-domain and three out-of-domain tasks.
- Main result: agent-distilled 0.5B, 1.5B and 3B students are competitive, on average, with CoT-distilled 1.5B, 3B and 7B models.
- Token cost: total generated tokens are about the same as with CoT distillation. Agents write more on factual tasks because of repeated retrieval calls. They write fewer on math because code (e.g., loops) handles repetitive calculation.
- Effect of self-consistent action generation: it reduces code parsing and execution errors, most clearly for the 0.5B model and on AIME. It adds little on HotpotQA and MuSiQue.
- Retrieval behaviour: larger students call retrieval more often. The first-thought prefix lowers the number of retrieval calls, which helps on Bamboogle but gives mixed results elsewhere. Code is released at github.com/Nardien/agent-distillation.
