Knowledge-Augmented Reasoning Distillation for Small Language Models in Knowledge-Intensive Tasks
Paper · 2023 · Minki Kang, Seanie Lee, Jinheon Baek et al.
Summary
Small language models are cheaper to run than API-only LLMs and better for privacy. However, they perform poorly when answers depend on large amounts of factual or domain knowledge, because their few parameters cannot store it all. Standard reasoning distillation trains a small model to reproduce rationales written by an LLM. This passes on reasoning skill but not the underlying facts. The authors propose KARD. The student model learns to generate LLM-written rationales and answers while conditioning on passages retrieved from an external knowledge base such as Wikipedia, which serves as non-parametric memory. A theoretical argument, extending the memorization analysis of Brown et al., shows that such memory reduces how much training data a model must memorize. At test time only the question can serve as the search query, and it often retrieves unhelpful passages. To fix this, a neural reranker is trained to favor documents that support rationale generation. On MedQA-USMLE, StrategyQA and OpenbookQA, KARD outperforms few-shot prompting, fine-tuning and distillation without retrieval for T5 and OPT students. This shows retrieval can compensate for limited model capacity.
Key points
-
Size efficiency: 250M-parameter T5 models trained with KARD beat fine-tuned 3B models, about 12× larger, on both MedQA-USMLE and StrategyQA.
-
Data efficiency: with 780M models, KARD trained on only 25% of the training set still outperforms fine-tuning on all of it.
-
Comparison with RAG (Flan-T5 base on MedQA-USMLE, T5 base on StrategyQA):
Method MedQA-USMLE StrategyQA KARD with reranker 38.15 56.57 RAG + reasoning distillation 24.84 54.24 Knowledge-augmented fine-tuning 33.39 52.11 RAG used DPR as its trainable retriever.
-
Failure analysis: the authors examined 30 MedQA cases where ChatGPT succeeded but KARD (Flan-T5 XL) failed. Half came from the reranker missing a relevant document. The other half came from the student reasoning incorrectly despite having good evidence.
-
Limitations and code: experiments cover only models under 3B parameters. There remains a gap between reranked passages and "silver" knowledge. Code is available at github.com/Nardien/KARD (NeurIPS 2023).
