A Sober Look at Progress in Language Model Reasoning: Pitfalls and Paths to Reproducibility
Paper · 2025 · Andreas Hochlehnert, Hardik Bhatnagar, Vishaal Udandarao et al.
Summary
Progress in mathematical reasoning for language models is often judged on small benchmarks under inconsistent evaluation setups. This paper asks how much of the reported progress holds up. The authors systematically measured how Pass@1 changes with random seeds, decoding settings (temperature, top_p), prompt templates, evaluation frameworks, and hardware and software stacks. They then re-tested many recent open-weight reasoning models, trained with either SFT or RL, under a single controlled protocol. The results show that scores move substantially with these supposedly minor choices. Many published improvements shrink when re-measured or sit inside the seed-to-seed variance of the base model. RL applied on top of DeepSeek-R1 distilled models brings little statistically meaningful benefit and tends to overfit to small test sets. SFT, by contrast, generalizes more reliably. The authors propose best practices and reporting standards and release a Dockerized evaluation stack with seed-averaged metrics and robust answer matching. This gives the community a more trustworthy basis for judging claims about reasoning.
Key points
- AIME'24 and AMC'23 each contain only about 30–40 problems, so a single question can change Pass@1 by more than 3 percentage points. Across seeds, scores can swing by double digits.
- When re-evaluated on AIME-24, 1.5B RL models such as DeepScaleR-1.5B, OpenRS3-1.5B, II-1.5B and FastCuRL-1.5B score below their reported results. Their gains fall within the variance range of DeepSeek-R1-Distill-1.5B. Open-RS results in particular did not survive repeated runs.
- RL directly on Qwen2.5-Math base models helps, but these models often trail instruction-tuned versions, with OpenReasoner-Zero-7B as an exception. RL models also lose ground on the newer AIME'25.
- Compared with DeepSeek-R1-Distill-1.5B, DeepScaleR-1.5B and FastCuRL-1.5B have lower Pass@k for k up to 128, which indicates diversity collapse. Longer responses also correlate with a higher chance of error.
- On MATH500, averaged over 15 seeds, a meaningless
łipsumprompt outperformed a dedicated Math prompt for Qwen2.5-Math-7B-Instruct. The authors release all code, prompts, and model outputs.
