Summary
Kirk et al. examine what each stage of the standard RLHF pipeline contributes to two properties of fine-tuned LLMs. The stages are supervised fine-tuning (SFT), reward modelling and PPO-based reinforcement learning. The two properties are handling inputs unlike the training data (OOD generalisation) and the variety of generated text. Best-of-N (BoN) sampling with the reward model serves as an extra baseline, which helps separate the reward model's effect from the optimisation method's effect.
The main experiments use LLaMa 7B on two tasks:
- summarisation, trained on TL;DR and tested on CNN/DailyMail;
- instruction following, based on AlpacaFarm.
OPT models at several scales provide additional trends. GPT-4 acts as a simulated human judge of quality. Diversity is measured with several validated metrics that capture lexical, semantic and logical variation.
RLHF outperforms SFT both in and out of distribution, and its lead grows as the train–test shift increases. However, it sharply narrows output variety. Practitioners therefore face a generalisation–diversity tension when choosing a fine-tuning method.
Key points
- The RLHF reward combines the reward model score with a KL penalty that keeps the policy close to the SFT model. The coefficient is β_KL = 0.05, following Stiennon et al.
- Diversity is measured with EAD (n-gram based), Sent BERT (semantic) and NLI (logical) scores. It is computed both per input (several samples for one prompt) and across inputs (one sample each for many prompts).
- Per-input diversity drops strongly under RLHF. For OPT 6.7b, EAD is 0.07 for RLHF versus 0.79 for SFT, and the averaged score is −0.47 versus 0.44.
- Across inputs, RLHF models are consistently less diverse on Sent BERT. This suggests they gravitate towards similar content regardless of the prompt.
- The OPT experiments span 125m to 6.7b parameters, freeze 80% of layers and use N = 64 for BoN. The code is released at github.com/facebookresearch/rlfh-gen-div.
