MPO: Multilingual Safety Alignment via Reward Gap Optimization
Paper · 2025 · Weixiang Zhao, Yulin Hu, Yang Deng et al.
Summary
Safety-tuned LLMs refuse harmful requests reliably in English but much less so in lower-resource languages. Running DPO-style preference training per language depends on machine-translated data, and that noisy data can weaken or even break alignment. The authors find that a model's implicit reward gap, the length-normalized log-likelihood margin between safe and unsafe answers, tracks safety: languages with small gaps have high attack success rates. They propose MPO (Multilingual reward gaP Optimization), which uses the frozen reference model's English reward gap as the training target and pulls each target language's gap toward it. A second loss keeps the dominant language's last-token hidden representations close to the reference model, so English ability is preserved. Experiments on LLaMA-3.1-8B-Instruct, Gemma-2-9B-it and Qwen2.5-7B-Instruct show MPO beats existing preference-learning methods on multilingual safety without hurting general multilingual utility. It also stays robust across training data of differing quality. The approach could apply to any under-resourced language, including Ukrainian, where good safety data is scarce.
Key points
- The reward gap is measured on 100 PKU-SafeRLHF pairs, machine-translated with the Google Translate API into Zh, Ko, Ar, Bn and Sw. For LLaMA-3.1, English has RG 1.58 and ASR 9%, while the low-resource languages fall to roughly 0.04–0.05 RG and 55–57% ASR.
- The six languages are grouped by resource level: high (En, Zh), medium (Ko, Ar) and low (Bn, Sw). English is the dominant language for LLaMA and Gemma; Qwen2.5 has two dominant languages, En and Zh.
- The reward gap is defined in the SimPO style, using average log-likelihood rather than the DPO reference ratio. Length normalization offsets the tendency of unsafe answers to be longer than refusals.
- The representation constraint replaces the usual KL regularization on logits. This choice is motivated by representation-engineering work showing that steering hidden states is effective.
- Code is available at github.com/circle-hit/MPO. The authors note as limitations that they tested only mid-size (7–9B) models and did not address multicultural value alignment.
